Problem Solving in Artificial Intelligence

The reflex agent of AI directly maps states into action. Whenever these agents fail to operate in an environment where the state of mapping is too large and not easily performed by the agent, then the stated problem dissolves and sent to a problem-solving domain which breaks the large stored problem into the smaller storage area and resolves one by one. The final integrated action will be the desired outcomes.

On the basis of the problem and their working domain, different types of problem-solving agent defined and use at an atomic level without any internal state visible with a problem-solving algorithm. The problem-solving agent performs precisely by defining problems and several solutions. So we can say that problem solving is a part of artificial intelligence that encompasses a number of techniques such as a tree, B-tree, heuristic algorithms to solve a problem.  

We can also say that a problem-solving agent is a result-driven agent and always focuses on satisfying the goals.

There are basically three types of problem in artificial intelligence:

1. Ignorable: In which solution steps can be ignored.

2. Recoverable: In which solution steps can be undone.

3. Irrecoverable: Solution steps cannot be undo.

Steps problem-solving in AI: The problem of AI is directly associated with the nature of humans and their activities. So we need a number of finite steps to solve a problem which makes human easy works.

These are the following steps which require to solve a problem :

  • Problem definition: Detailed specification of inputs and acceptable system solutions.
  • Problem analysis: Analyse the problem thoroughly.
  • Knowledge Representation: collect detailed information about the problem and define all possible techniques.
  • Problem-solving: Selection of best techniques.

Components to formulate the associated problem: 

  • Initial State: This state requires an initial state for the problem which starts the AI agent towards a specified goal. In this state new methods also initialize problem domain solving by a specific class.
  • Action: This stage of problem formulation works with function with a specific class taken from the initial state and all possible actions done in this stage.
  • Transition: This stage of problem formulation integrates the actual action done by the previous action stage and collects the final stage to forward it to their next stage.
  • Goal test: This stage determines that the specified goal achieved by the integrated transition model or not, whenever the goal achieves stop the action and forward into the next stage to determines the cost to achieve the goal.  
  • Path costing: This component of problem-solving numerical assigned what will be the cost to achieve the goal. It requires all hardware software and human working cost.

Leaders face more complex decisions than ever before. For example, many must deliver new and better services for their communities while meeting sustainability and equity goals. At the same time, many need to find ways to operate and manage their budgets more efficiently. So how can these leaders make complex decisions and get them right in an increasingly tricky business landscape? The answer lies in harnessing technological tools like Artificial Intelligence (AI).

What is AI?

AI can help leaders in several different ways. It can be used to process and make decisions on large amounts of data more quickly and accurately. AI can also help identify patterns and trends that would otherwise be undetectable. This information can then be used to inform strategic decision-making, which is why AI is becoming an increasingly important tool for businesses and governments. A recent study by PwC found that 52% of companies accelerated their AI adoption plans in the last year. In addition, 86% of companies believe that AI will become a mainstream technology at their company imminently. As AI becomes more central in the business world, leaders need to understand how this technology works and how they can best integrate it into their operations.

At its simplest, AI is a computer system that can learn and work independently without human intervention. This ability makes AI a powerful tool. With AI, businesses and public agencies can automate tasks, get insights from data, and make decisions with little or no human input. Consequently, AI can be a valuable problem-solving tool for leaders across the private and public sectors, primarily through three methods.

1) Automation

One of AI’s most beneficial ways to help leaders is by automating tasks. This can free up time to focus on other essential things. For example, AI can help a city save valuable human resources by automating parking enforcement. In addition, this will help improve the accuracy of detecting violations and prevent costly mistakes. Automation can also help with things like appointment scheduling and fraud detection.

2) Insights from data

Another way AI can help leaders solve problems is by providing insights from data. With AI, businesses can gather large amounts of data and then use that data to make better decisions. For example, suppose a company is trying to decide which products to sell. In that case, AI can be used to gather data about customer buying habits and then use that data to make recommendations about which products to market.

3) Simulations

Finally, AI can help leaders solve problems by allowing them to create simulations. With AI, organizations can test out different decision scenarios and see what the potential outcomes could be. This can help leaders make better decisions by examining the consequences of their choices. For example, a city might use AI to simulate different traffic patterns to see how a new road layout would impact congestion.

Illegal parking in bus lanes is a major problem for cities and their transit agencies. Cars and trucks illegally parked in bus lanes force buses to merge into general traffic lanes, significantly slowing down transit service and making riders’ trips longer. That’s where a company like Hayden AI comes in. “Hayden AI uses artificial intelligence and machine learning algorithms to detect and process illegal parking in bus lanes in real-time so that cities can take proactive measures to address the problem ,” Carson observes.

In this case, an AI-powered camera system is installed on each bus. The camera system uses computer vision to “watch” the street for illegal parking in the bus lane. When it detects a traffic violation, it sends the data back to the parking authority. This allows the parking authority to take action, such as sending a ticket to the offending vehicle’s owner.

The effectiveness of AI is entirely dependent on how you use it. As former Accenture chief technology strategist Bob Suh notes in the Harvard Business Review, problem-solving is best when combined with AI and human ingenuity. “In other words, it’s not about the technology itself; it’s about how you use the technology that matters. AI is not a panacea for all ills. Still, when incorporated into a company’s problem-solving repertoire, it can be an enormously powerful tool,” concludes Terence Mauri, founder of Hack Future Lab, a global think tank.

Split the Responsibility

Huda Khan, an academic researcher from the University of Aberdeen, believes that AI is critical for international companies’ success, especially in the era of disruption. Khan is calling international marketing academics’ research attention towards exploring such transformative approaches in terms of how these inform competitive business practices, as are international marketing academics Michael Christofi from the Cyprus University of Technology; Richard Lee from the University of South Australia; Viswanathan Kumar from St. John University; and Kelly Hewett from the University of Tennessee. “AI is very good at automating repetitive tasks, such as customer service or data entry. But it’s not so good at creative tasks, such as developing new products,” Khan says. “So, businesses need to think about what tasks they want to automate and what tasks they want to keep for humans.”

Khan believes that businesses need to split the responsibility between AI and humans. For example, Hayden AI’s system is highly accurate and only sends evidence packages of potential violations for human review. Once the data is sent, human analysis is still needed to make the final decision. But with much less work to do, government agencies can devote their employees to tasks that can’t be automated.

Backed up by efficient, effective data analysis, human problem-solving can be more innovative than ever. Like all business transitions, developing the best system for combining human and AI work might take some experimentation, but it can significantly impact future success. For example, if a company is trying to improve its customer service, it can use AI startup Satisfi’s natural language processing technology . This technology can understand a customer’s question and find the best answer from a company’s knowledge base. Likewise, if a company tries to increase sales, it can use AI startup Persado’s marketing language generation technology . This technology can be used to create more effective marketing campaigns by understanding what motivates customers and then generating language that is more likely to persuade them to make a purchase.

Look at the Big Picture

A technological solution can frequently improve performance in multiple areas simultaneously. For instance, Hayden AI’s automated enforcement system doesn’t just help speed up transit by keeping bus lanes clear for buses; it also increases data security by limiting how much data is kept for parking enforcement, which allows a city to increase the efficiency of its transportation while also protecting civil liberties.

This is the case with many technological solutions. For example, an e-commerce business might adopt a better data architecture to power a personalized recommendation option and benefit from improved SEO. As a leader, you can use your big-picture view of your company to identify critical secondary benefits of technologies. Once you have the technologies in use, you can also fine-tune your system to target your most important priorities at once.

In summary, AI technology is constantly evolving, becoming more accessible and affordable for businesses of all sizes. By harnessing the power of AI, leaders can make better decisions, improve efficiency, and drive innovation. However, it’s important to remember that AI is not a silver bullet. Therefore, organizations must use AI and humans to get the best results.

AI accelerates problem-solving in complex scenarios

While Santa Claus may have a magical sleigh and nine plucky reindeer to help him deliver presents, for companies like FedEx, the optimization problem of efficiently routing holiday packages is so complicated that they often employ specialized software to find a solution.

This software, called a mixed-integer linear programming (MILP) solver, splits a massive optimization problem into smaller pieces and uses generic algorithms to try and find the best solution. However, the solver could take hours — or even days — to arrive at a solution.

The process is so onerous that a company often must stop the software partway through, accepting a solution that is not ideal but the best that could be generated in a set amount of time.

Researchers from MIT and ETH Zurich used machine learning to speed things up.

They identified a key intermediate step in MILP solvers that has so many potential solutions it takes an enormous amount of time to unravel, which slows the entire process. The researchers employed a filtering technique to simplify this step, then used machine learning to find the optimal solution for a specific type of problem.

Their data-driven approach enables a company to use its own data to tailor a general-purpose MILP solver to the problem at hand.

This new technique sped up MILP solvers between 30 and 70 percent, without any drop in accuracy. One could use this method to obtain an optimal solution more quickly or, for especially complex problems, a better solution in a tractable amount of time.

This approach could be used wherever MILP solvers are employed, such as by ride-hailing services, electric grid operators, vaccination distributors, or any entity faced with a thorny resource-allocation problem.

“Sometimes, in a field like optimization, it is very common for folks to think of solutions as either purely machine learning or purely classical. I am a firm believer that we want to get the best of both worlds, and this is a really strong instantiation of that hybrid approach,” says senior author Cathy Wu, the Gilbert W. Winslow Career Development Assistant Professor in Civil and Environmental Engineering (CEE), and a member of a member of the Laboratory for Information and Decision Systems (LIDS) and the Institute for Data, Systems, and Society (IDSS).

Wu wrote the paper with co-lead authors Sirui Li, an IDSS graduate student, and Wenbin Ouyang, a CEE graduate student; as well as Max Paulus, a graduate student at ETH Zurich. The research will be presented at the Conference on Neural Information Processing Systems.

Tough to solve

MILP problems have an exponential number of potential solutions. For instance, say a traveling salesperson wants to find the shortest path to visit several cities and then return to their city of origin. If there are many cities which could be visited in any order, the number of potential solutions might be greater than the number of atoms in the universe.  

“These problems are called NP-hard, which means it is very unlikely there is an efficient algorithm to solve them. When the problem is big enough, we can only hope to achieve some suboptimal performance,” Wu explains.

An MILP solver employs an array of techniques and practical tricks that can achieve reasonable solutions in a tractable amount of time.

A typical solver uses a divide-and-conquer approach, first splitting the space of potential solutions into smaller pieces with a technique called branching. Then, the solver employs a technique called cutting to tighten up these smaller pieces so they can be searched faster.

Cutting uses a set of rules that tighten the search space without removing any feasible solutions. These rules are generated by a few dozen algorithms, known as separators, that have been created for different kinds of MILP problems. 

Wu and her team found that the process of identifying the ideal combination of separator algorithms to use is, in itself, a problem with an exponential number of solutions.

“Separator management is a core part of every solver, but this is an underappreciated aspect of the problem space. One of the contributions of this work is identifying the problem of separator management as a machine learning task to begin with,” she says.

Shrinking the solution space

She and her collaborators devised a filtering mechanism that reduces this separator search space from more than 130,000 potential combinations to around 20 options. This filtering mechanism draws on the principle of diminishing marginal returns, which says that the most benefit would come from a small set of algorithms, and adding additional algorithms won’t bring much extra improvement.

Then they use a machine-learning model to pick the best combination of algorithms from among the 20 remaining options.

This model is trained with a dataset specific to the user’s optimization problem, so it learns to choose algorithms that best suit the user’s particular task. Since a company like FedEx has solved routing problems many times before, using real data gleaned from past experience should lead to better solutions than starting from scratch each time.

The model’s iterative learning process, known as contextual bandits, a form of reinforcement learning, involves picking a potential solution, getting feedback on how good it was, and then trying again to find a better solution.

This data-driven approach accelerated MILP solvers between 30 and 70 percent without any drop in accuracy. Moreover, the speedup was similar when they applied it to a simpler, open-source solver and a more powerful, commercial solver.

In the future, Wu and her collaborators want to apply this approach to even more complex MILP problems, where gathering labeled data to train the model could be especially challenging. Perhaps they can train the model on a smaller dataset and then tweak it to tackle a much larger optimization problem, she says. The researchers are also interested in interpreting the learned model to better understand the effectiveness of different separator algorithms.

This research is supported, in part, by Mathworks, the National Science Foundation (NSF), the MIT Amazon Science Hub, and MIT’s Research Support Committee.

The Intersection of Math and AI: A New Era in Problem-Solving

Conference is exploring burgeoning connections between the two fields.

Traditionally, mathematicians jot down their formulas using paper and pencil, seeking out what they call pure and elegant solutions. In the 1970s, they hesitantly began turning to computers to assist with some of their problems. Decades later, computers are often used to crack the hardest math puzzles. Now, in a similar vein, some mathematicians are turning to machine learning tools to aid in their numerical pursuits.

Embracing Machine Learning in Mathematics

“Mathematicians are beginning to embrace machine learning,” says Sergei Gukov, the John D. MacArthur Professor of Theoretical Physics and Mathematics at Caltech, who put together the Mathematics and Machine Learning 2023 conference, which is taking place at Caltech December 10–13.

“There are some mathematicians who may still be skeptical about using the tools,” Gukov says. “The tools are mischievous and not as pure as using paper and pencil, but they work.”

Machine Learning: A New Era in Mathematical Problem Solving

Machine learning is a subfield of AI, or artificial intelligence , in which a computer program is trained on large datasets and learns to find new patterns and make predictions. The conference, the first put on by the new Richard N. Merkin Center for Pure and Applied Mathematics, will help bridge the gap between developers of machine learning tools (the data scientists) and the mathematicians. The goal is to discuss ways in which the two fields can complement each other.

Mathematics and Machine Learning: A Two-Way Street

“It’s a two-way street,” says Gukov, who is the director of the new Merkin Center, which was established by Caltech Trustee Richard Merkin.

“Mathematicians can help come up with clever new algorithms for machine learning tools like the ones used in generative AI programs like ChatGPT, while machine learning can help us crack difficult math problems.”

Yi Ni, a professor of mathematics at Caltech, plans to attend the conference, though he says he does not use machine learning in his own research, which involves the field of topology and, specifically, the study of mathematical knots in lower dimensions. “Some mathematicians are more familiar with these advanced tools than others,” Ni says. “You need to know somebody who is an expert in machine learning and willing to help. Ultimately, I think AI for math will become a subfield of math.”

The Riemann Hypothesis and Machine Learning

One tough problem that may unravel with the help of machine learning, according to Gukov, is known as the Riemann hypothesis. Named after the 19th-century mathematician Bernhard Riemann, this problem is one of seven Millennium Problems selected by the Clay Mathematics Institute; a $1 million prize will be awarded for the solution to each problem.

The Riemann hypothesis centers around a formula known as the Riemann zeta function, which packages information about prime numbers. If proved true, the hypothesis would provide a new understanding of how prime numbers are distributed. Machine learning tools could help crack the problem by providing a new way to run through more possible iterations of the problem.

Mathematicians and Machine Learning: A Synergistic Relationship

“Machine learning tools are very good at recognizing patterns and analyzing very complex problems,” Gukov says.

Ni agrees that machine learning can serve as a helpful assistant. “Machine learning solutions may not be as beautiful, but they can find new connections,” he says. “But you still need a mathematician to turn the questions into something computers can solve.”

Knot Theory and Machine Learning

Gukov has used machine learning himself to untangle problems in knot theory. Knot theory is the study of abstract knots, which are similar to the knots you might find on a shoestring, but the ends of the strings are closed into loops. These mathematical knots can be entwined in various ways, and mathematicians like Gukov want to understand their structures and how they relate to each other. The work has relationships to other fields of mathematics such as representation theory and quantum algebra, and even quantum physics.

In particular, Gukov and his colleagues are working to solve what is called the smooth Poincaré conjecture in four dimensions. The original Poincaré conjecture, which is also a Millennium Problem, was proposed by mathematician Henri Poincaré early in the 20th century. It was ultimately solved from 2002 to 2003 by Grigori Perelman (who famously turned down his prize of $1 million). The problem involves comparing spheres to certain types of manifolds that look like spheres; manifolds are shapes that are projections of higher-dimensional objects onto lower dimensions. Gukov says the problem is like asking, “Are objects that look like spheres really spheres?”

The four-dimensional smooth Poincaré conjecture holds that, in four dimensions, all manifolds that look like spheres are indeed actually spheres. In an attempt to solve this conjecture, Gukov and his team develop a machine learning approach to evaluate so-called ribbon knots.

“Our brain cannot handle four dimensions, so we package shapes into knots,” Gukov says. “A ribbon is where the string in a knot pierces through a different part of the string in three dimensions but doesn’t pierce through anything in four dimensions. Machine learning lets us analyze the ‘ribboness’ of knots, a yes-or-no property of knots that has applications to the smooth Poincaré conjecture.”

“This is where machine learning comes to the rescue,” writes Gukov and his team in a preprint paper titled “ Searching for Ribbons with Machine Learning .” “It has the ability to quickly search through many potential solutions and, more importantly, to improve the search based on the successful ‘games’ it plays. We use the word ‘games’ since the same types of algorithms and architectures can be employed to play complex board games, such as Go or chess, where the goals and winning strategies are similar to those in math problems.”

The Interplay of Mathematics and Machine Learning Algorithms

On the flip side, math can help in developing machine learning algorithms, Gukov explains. A mathematical mindset, he says, can bring fresh ideas to the development of the algorithms behind AI tools. He cites Peter Shor as an example of a mathematician who brought insight to computer science problems. Shor, who graduated from Caltech with a bachelor’s degree in mathematics in 1981, famously came up with what is known as Shor’s algorithm, a set of rules that could allow quantum computers of the future to factor integers faster than typical computers, thereby breaking digital encryption codes.

Today’s machine learning algorithms are trained on large sets of data. They churn through mountains of data on language, images, and more to recognize patterns and come up with new connections. However, data scientists don’t always know how the programs reach their conclusions. The inner workings are hidden in a so-called “black box.” A mathematical approach to developing the algorithms would reveal what’s happening “under the hood,” as Gukov says, leading to a deeper understanding of how the algorithms work and thus can be improved.

“Math,” says Gukov, “is fertile ground for new ideas.”

The conference will take place at the Merkin Center on the eighth floor of Caltech Hall.

Chapter 3 Solving Problems by Searching 

When the correct action to take is not immediately obvious, an agent may need to plan ahead : to consider a sequence of actions that form a path to a goal state. Such an agent is called a problem-solving agent , and the computational process it undertakes is called search .

Problem-solving agents use atomic representations, that is, states of the world are considered as wholes, with no internal structure visible to the problem-solving algorithms. Agents that use factored or structured representations of states are called planning agents .

We distinguish between informed algorithms, in which the agent can estimate how far it is from the goal, and uninformed algorithms, where no such estimate is available.

3.1 Problem-Solving Agents 

If the agent has no additional information—that is, if the environment is unknown —then the agent can do no better than to execute one of the actions at random. For now, we assume that our agents always have access to information about the world. With that information, the agent can follow this four-phase problem-solving process:

GOAL FORMULATION : Goals organize behavior by limiting the objectives and hence the actions to be considered.

PROBLEM FORMULATION : The agent devises a description of the states and actions necessary to reach the goal—an abstract model of the relevant part of the world.

SEARCH : Before taking any action in the real world, the agent simulates sequences of actions in its model, searching until it finds a sequence of actions that reaches the goal. Such a sequence is called a solution .

EXECUTION : The agent can now execute the actions in the solution, one at a time.

It is an important property that in a fully observable, deterministic, known environment, the solution to any problem is a fixed sequence of actions . The open-loop system means that ignoring the percepts breaks the loop between agent and environment. If there is a chance that the model is incorrect, or the environment is nondeterministic, then the agent would be safer using a closed-loop approach that monitors the percepts.

In partially observable or nondeterministic environments, a solution would be a branching strategy that recommends different future actions depending on what percepts arrive.

3.1.1 Search problems and solutions 

A search problem can be defined formally as follows:

A set of possible states that the environment can be in. We call this the state space .

The initial state that the agent starts in.

A set of one or more goal states . We can account for all three of these possibilities by specifying an \(Is\-Goal\) method for a problem.

The actions available to the agent. Given a state \(s\) , \(Actions(s)\) returns a finite set of actions that can be executed in \(s\) . We say that each of these actions is applicable in \(s\) .

A transition model , which describes what each action does. \(Result(s,a)\) returns the state that results from doing action \(a\) in state \(s\) .

An action cost function , denote by \(Action\-Cost(s,a,s\pr)\) when we are programming or \(c(s,a,s\pr)\) when we are doing math, that gives the numeric cost of applying action \(a\) in state \(s\) to reach state \(s\pr\) .

A sequence of actions forms a path , and a solution is a path from the initial state to a goal state. We assume that action costs are additive; that is, the total cost of a path is the sum of the individual action costs. An optimal solution has the lowest path cost among all solutions.

The state space can be represented as a graph in which the vertices are states and the directed edges between them are actions.

3.1.2 Formulating problems 

The process of removing detail from a representation is called abstraction . The abstraction is valid if we can elaborate any abstract solution into a solution in the more detailed world. The abstraction is useful if carrying out each of the actions in the solution is easier than the original problem.

3.2 Example Problems 

A standardized problem is intended to illustrate or exercise various problem-solving methods. It can be given a concise, exact description and hence is suitable as a benchmark for researchers to compare the performance of algorithms. A real-world problem , such as robot navigation, is one whose solutions people actually use, and whose formulation is idiosyncratic, not standardized, because, for example, each robot has different sensors that produce different data.

3.2.1 Standardized problems 

A grid world problem is a two-dimensional rectangular array of square cells in which agents can move from cell to cell.

3.3 Search Algorithms 

A search algorithm takes a search problem as input and returns a solution, or an indication of failure. We consider algorithms that superimpose a search tree over the state-space graph, forming various paths from the initial state, trying to find a path that reaches a goal state. Each node in the search tree corresponds to a state in the state space and the edges in the search tree correspond to actions. The root of the tree corresponds to the initial state of the problem.

The state space describes the (possibly infinite) set of states in the world, and the actions that allow transitions from one state to another. The search tree describes paths between these states, reaching towards the goal. The search tree may have multiple paths to (and thus multiple nodes for) any given state, but each node in the tree has a unique path back to the root (as in all trees).

The frontier separates two regions of the state-space graph: an interior region where every state has been expanded, and an exterior region of states that have not yet been reached.

3.3.1 Best-first search 

In best-first search we choose a node, \(n\) , with minimum value of some evaluation function , \(f(n)\) .

3.3.2 Search data structures 

A node in the tree is represented by a data structure with four components

\(node.State\) : the state to which the node corresponds;

\(node.Parent\) : the node in the tree that generated this node;

\(node.Action\) : the action that was applied to the parent’s state to generate this node;

\(node.Path\-Cost\) : the total cost of the path from the initial state to this node. In mathematical formulas, we use \(g(node)\) as a synonym for \(Path\-Cost\) .

Following the \(PARENT\) pointers back from a node allows us to recover the states and actions along the path to that node. Doing this from a goal node gives us the solution.

We need a data structure to store the frontier . The appropriate choice is a queue of some kind, because the operations on a frontier are:

\(Is\-Empty(frontier)\) returns true only if there are no nodes in the frontier.

\(Pop(frontier)\) removes the top node from the frontier and returns it.

\(Top(frontier)\) returns (but does not remove) the top node of the frontier.

\(Add(node, frontier)\) inserts node into its proper place in the queue.

Three kinds of queues are used in search algorithms:

A priority queue first pops the node with the minimum cost according to some evaluation function, \(f\) . It is used in best-first search.

A FIFO queue or first-in-first-out queue first pops the node that was added to the queue first; we shall see it is used in breadth-first search.

A LIFO queue or last-in-first-out queue (also known as a stack ) pops first the most recently added node; we shall see it is used in depth-first search.

3.3.3 Redundant paths 

A cycle is a special case of a redundant path .

As the saying goes, algorithms that cannot remember the past are doomed to repeat it . There are three approaches to this issue.

First, we can remember all previously reached states (as best-first search does), allowing us to detect all redundant paths, and keep only the best path to each state.

Second, we can not worry about repeating the past. We call a search algorithm a graph search if it checks for redundant paths and a tree-like search if it does not check.

Third, we can compromise and check for cycles, but not for redundant paths in general.

3.3.4 Measuring problem-solving performance 

COMPLETENESS : Is the algorithm guaranteed to find a solution when there is one, and to correctly report failure when there is not?

COST OPTIMALITY : Does it find a solution with the lowest path cost of all solutions?

TIME COMPLEXITY : How long does it take to find a solution?

SPACE COMPLEXITY : How much memory is needed to perform the search?

To be complete, a search algorithm must be systematic in the way it explores an infinite state space, making sure it can eventually reach any state that is connected to the initial state.

In theoretical computer science, the typical measure of time and space complexity is the size of the state-space graph, \(|V|+|E|\) , where \(|V|\) is the number of vertices (state nodes) of the graph and \(|E|\) is the number of edges (distinct state/action pairs). For an implicit state space, complexity can be measured in terms of \(d\) , the depth or number of actions in an optimal solution; \(m\) , the maximum number of actions in any path; and \(b\) , the branching factor or number of successors of a node that need to be considered.

3.4 Uninformed Search Strategies 

3.4.1 breadth-first search .

When all actions have the same cost, an appropriate strategy is breadth-first search , in which the root node is expanded first, then all the successors of the root node are expanded next, then their successors, and so on.

Breadth-first search always finds a solution with a minimal number of actions, because when it is generating nodes at depth \(d\) , it has already generated all the nodes at depth \(d-1\) , so if one of them were a solution, it would have been found.

All the nodes remain in memory, so both time and space complexity are \(O(b^d)\) . The memory requirements are a bigger problem for breadth-first search than the execution time . In general, exponential-complexity search problems cannot be solved by uninformed search for any but the smallest instances .

3.4.2 Dijkstra’s algorithm or uniform-cost search 

When actions have different costs, an obvious choice is to use best-first search where the evaluation function is the cost of the path from the root to the current node. This is called Dijkstra’s algorithm by the theoretical computer science community, and uniform-cost search by the AI community.

The complexity of uniform-cost search is characterized in terms of \(C^*\) , the cost of the optimal solution, and \(\epsilon\) , a lower bound on the cost of each action, with \(\epsilon>0\) . Then the algorithm’s worst-case time and space complexity is \(O(b^{1+\lfloor C^*/\epsilon\rfloor})\) , which can be much greater than \(b^d\) .

When all action costs are equal, \(b^{1+\lfloor C^*/\epsilon\rfloor}\) is just \(b^{d+1}\) , and uniform-cost search is similar to breadth-first search.

3.4.3 Depth-first search and the problem of memory 

Depth-first search always expands the deepest node in the frontier first. It could be implemented as a call to \(Best\-First\-Search\) where the evaluation function \(f\) is the negative of the depth.

For problems where a tree-like search is feasible, depth-first search has much smaller needs for memory. A depth-first tree-like search takes time proportional to the number of states, and has memory complexity of only \(O(bm)\) , where \(b\) is the branching factor and \(m\) is the maximum depth of the tree.

A variant of depth-first search called backtracking search uses even less memory.

3.4.4 Depth-limited and iterative deepening search 

To keep depth-first search from wandering down an infinite path, we can use depth-limited search , a version of depth-first search in which we supply a depth limit, \(l\) , and treat all nodes at depth \(l\) as if they had no successors. The time complexity is \(O(b^l)\) and the space complexity is \(O(bl)\)

Iterative deepening search solves the problem of picking a good value for \(l\) by trying all values: first 0, then 1, then 2, and so on—until either a solution is found, or the depth- limited search returns the failure value rather than the cutoff value.

Its memory requirements are modest: \(O(bd)\) when there is a solution, or \(O(bm)\) on finite state spaces with no solution. The time complexity is \(O(bd)\) when there is a solution, or \(O(bm)\) when there is none.

In general, iterative deepening is the preferred uninformed search method when the search state space is larger than can fit in memory and the depth of the solution is not known .

3.4.5 Bidirectional search 

An alternative approach called bidirectional search simultaneously searches forward from the initial state and backwards from the goal state(s), hoping that the two searches will meet.

3.5 Informed (Heuristic) Search Strategies 

An informed search strategy uses domain–specific hints about the location of goals to find colutions more efficiently than an uninformed strategy. The hints come in the form of a heuristic function , denoted \(h(n)\) :

\(h(n)\) = estimated cost of the cheapest path from the state at node \(n\) to a goal state.

3.5.1 Greedy best-first search 

Greedy best-first search is a form of best-first search that expands first the node with the lowest \(h(n)\) value—the node that appears to be closest to the goal—on the grounds that this is likely to lead to a solution quickly. So the evaluation function \(f(n)=h(n)\) .

Artificial intelligence (AI) is technology that enables computers and machines to simulate human learning, comprehension, problem solving, decision making, creativity and autonomy.

Applications and devices equipped with AI can see and identify objects. They can understand and respond to human language. They can learn from new information and experience. They can make detailed recommendations to users and experts. They can act independently, replacing the need for human intelligence or intervention (a classic example being a self-driving car). 

But in 2024, most AI researchers and practitioners—and most AI-related headlines—are focused on breakthroughs in generative AI  (gen AI), a technology that can create original text, images, video and other content. To fully understand generative AI, it’s important to first understand the technologies on which generative AI tools are built: machine learning  (ML) and deep learning .

A simple way to think about AI is as a series of nested or derivative concepts that have emerged over more than 70 years:  

Directly underneath AI, we have machine learning, which involves creating models by training an algorithm to make predictions or decisions based on data. It encompasses a broad range of techniques that enable computers to learn from and make inferences based on data without being explicitly programmed for specific tasks. 

There are many types of machine learning techniques or algorithms, including linear regression ,  logistic regression , decision trees , random forest , support vector machines   (SVMs) , k-nearest neighbor (KNN), clustering and more. Each of these approaches is suited to different kinds of problems and data.

But one of the most popular types of machine learning algorithm is called a neural network (or artificial neural network). Neural networks are modeled after the human brain's structure and function. A neural network consists of interconnected layers of nodes (analogous to neurons) that work together to process and analyze complex data. Neural networks are well suited to tasks that involve identifying complex patterns and relationships in large amounts of data.

The simplest form of machine learning is called supervised learning , which involves the use of labeled data sets to train algorithms to classify data or predict outcomes accurately. In supervised learning, humans pair each training example with an output label. The goal is for the model to learn the mapping between inputs and outputs in the training data, so it can predict the labels of new, unseen data.

Deep learning is a subset of machine learning that uses multilayered neural networks, called deep neural networks, that more closely simulate the complex decision-making power of the human brain.

Deep neural networks include an input layer, at least three but usually hundreds of hidden layers, and an output layer, unlike neural networks used in classic machine learning models, which usually have only one or two hidden layers.

These multiple layers enable unsupervised learning : they can automate the extraction of features from large, unlabeled and unstructured data sets, and make their own predictions about what the data represents.

Because deep learning doesn’t require human intervention, it enables machine learning at a tremendous scale. It is well suited to natural language processing (NLP) , computer vision , and other tasks that involve the fast, accurate identification complex patterns and relationships in large amounts of data. Some form of deep learning powers most of the artificial intelligence (AI) applications in our lives today.  

Deep learning also enables:

  • Semi-supervised learning , which combines supervised and unsupervised learning by using both labeled and unlabeled data to train AI models for classification and regression tasks.
  • Self-supervised learning , which generates implicit labels from unstructured data, rather than relying on labeled data sets for supervisory signals.
  • Reinforcement learning , which learns by trial-and-error and reward functions rather than by extracting information from hidden patterns.
  • Transfer learning , in which knowledge gained through one task or data set is used to improve model performance on another related task or different data set.

Generative AI, sometimes called "gen AI" , refers to deep learning models that can create complex original content—such as long-form text, high-quality images, realistic video or audio and more—in response to a user’s prompt or request.

At a high level, generative models encode a simplified representation of their training data, and then draw from that representation to create new work that’s similar, but not identical, to the original data.

Generative models have been used for years in statistics to analyze numerical data. But over the last decade, they evolved to analyze and generate more complex data types. This evolution coincided with the emergence of three sophisticated deep learning model types:

  • Variational autoencoders  or VAEs, which were introduced in 2013, and enabled models that could generate multiple variations of content in response to a prompt or instruction.
  • Diffusion models, first seen in 2014, which add "noise" to images until they are unrecognizable, and then remove the noise to generate original images in response to prompts.
  • Transformers (also called transformer models), which are trained on sequenced data to generate extended sequences of content (such as words in sentences, shapes in an image, frames of a video or commands in software code). Transformers are at the core of most of today’s headline-making generative AI tools, including ChatGPT and GPT-4, Copilot, BERT, Bard and Midjourney. 

In general, generative AI operates in three phases:

  • Training, to create a foundation model.
  • Tuning, to adapt the model to a specific application.
  • Generation, evaluation and more tuning, to improve accuracy.

Generative AI begins with a "foundation model"; a deep learning model that serves as the basis for multiple different types of generative AI applications.

The most common foundation models today are large language models (LLMs) , created for text generation applications. But there are also foundation models for image, video, sound or music generation, and multimodal foundation models that support several kinds of content.

To create a foundation model, practitioners train a deep learning algorithm on huge volumes of relevant raw, unstructured, unlabeled data, such as terabytes or petabytes of data text or images or video from the internet. The training yields a neural network of billions of parameters —encoded representations of the entities, patterns and relationships in the data—that can generate content autonomously in response to prompts. This is the foundation model.

This training process is compute-intensive, time-consuming and expensive. It requires thousands of clustered graphics processing units (GPUs) and weeks of processing, all of which typically costs millions of dollars. Open source foundation model projects, such as Meta's Llama-2, enable gen AI developers to avoid this step and its costs.

Next, the model must be tuned to a specific content generation task. This can be done in various ways, including:

  • Fine-tuning, which involves feeding the model application-specific labeled data—questions or prompts the application is likely to receive, and corresponding correct answers in the wanted format.
  • Reinforcement learning with human feedback (RLHF), in which human users evaluate the accuracy or relevance of model outputs so that the model can improve itself. This can be as simple as having people type or talk back corrections to a chatbot or virtual assistant.

Generation, evaluation and more tuning  

Developers and users regularly assess the outputs of their generative AI apps, and further tune the model—even as often as once a week—for greater accuracy or relevance. In contrast, the foundation model itself is updated much less frequently, perhaps every year or 18 months.

Another option for improving a gen AI app's performance is retrieval augmented generation (RAG), a technique for extending the foundation model to use relevant sources outside of the training data to refine the parameters for greater accuracy or relevance.

AI offers numerous benefits across various industries and applications. Some of the most commonly cited benefits include:

  • Automation of repetitive tasks.
  • More and faster insight from data.
  • Enhanced decision-making.
  • Fewer human errors.
  • 24x7 availability.
  • Reduced physical risks.

Automation of repetitive tasks  

AI can automate routine, repetitive and often tedious tasks—including digital tasks such as data collection, entering and preprocessing, and physical tasks such as warehouse stock-picking and manufacturing processes. This automation frees to work on higher value, more creative work.

Enhanced decision-making  

Whether used for decision support or for fully automated decision-making, AI enables faster, more accurate predictions and reliable, data-driven decisions . Combined with automation, AI enables businesses to act on opportunities and respond to crises as they emerge, in real time and without human intervention.

Fewer human errors  

AI can reduce human errors in various ways, from guiding people through the proper steps of a process, to flagging potential errors before they occur, and fully automating processes without human intervention. This is especially important in industries such as healthcare where, for example, AI-guided surgical robotics enable consistent precision.

Machine learning algorithms can continually improve their accuracy and further reduce errors as they're exposed to more data and "learn" from experience.

Round-the-clock availability and consistency  

AI is always on, available around the clock, and delivers consistent performance every time. Tools such as AI chatbots or virtual assistants can lighten staffing demands for customer service or support. In other applications—such as materials processing or production lines—AI can help maintain consistent work quality and output levels when used to complete repetitive or tedious tasks.

Reduced physical risk  

By automating dangerous work—such as animal control, handling explosives, performing tasks in deep ocean water, high altitudes or in outer space—AI can eliminate the need to put human workers at risk of injury or worse. While they have yet to be perfected, self-driving cars and other vehicles offer the potential to reduce the risk of injury to passengers.

The real-world applications of AI are many. Here is just a small sampling of use cases across various industries to illustrate its potential:

Customer experience, service and support  

Companies can implement AI-powered chatbots and virtual assistants to handle customer inquiries, support tickets and more. These tools use natural language processing (NLP) and generative AI capabilities to understand and respond to customer questions about order status, product details and return policies.

Chatbots and virtual assistants enable always-on support, provide faster answers to frequently asked questions (FAQs), free human agents to focus on higher-level tasks, and give customers faster, more consistent service.

Fraud detection  

Machine learning and deep learning algorithms can analyze transaction patterns and flag anomalies, such as unusual spending or login locations, that indicate fraudulent transactions. This enables organizations to respond more quickly to potential fraud and limit its impact, giving themselves and customers greater peace of mind.

Personalized marketing  

Retailers, banks and other customer-facing companies can use AI to create personalized customer experiences and marketing campaigns that delight customers, improve sales and prevent churn. Based on data from customer purchase history and behaviors, deep learning algorithms can recommend products and services customers are likely to want, and even generate personalized copy and special offers for individual customers in real time.

Human resources and recruitment  

AI-driven recruitment platforms can streamline hiring by screening resumes, matching candidates with job descriptions, and even conducting preliminary interviews using video analysis. These and other tools can dramatically reduce the mountain of administrative paperwork associated with fielding a large volume of candidates. It can also reduce response times and time-to-hire, improving the experience for candidates whether they get the job or not.

Application development and modernization  

Generative AI code generation tools and automation tools can streamline repetitive coding tasks associated with application development, and accelerate the migration and modernization (reformatting and replatorming) of legacy applications at scale. These tools can speed up tasks, help ensure code consistency and reduce errors.

Predictive maintenance  

Machine learning models can analyze data from sensors, Internet of Things (IoT) devices and operational technology (OT) to forecast when maintenance will be required and predict equipment failures before they occur. AI-powered preventive maintenance helps prevent downtime and enables you to stay ahead of supply chain issues before they affect the bottom line.

Organizations are scrambling to take advantage of the latest AI technologies and capitalize on AI's many benefits. This rapid adoption is necessary, but adopting and maintaining AI workflows comes with challenges and risks. 

Data risks  

AI systems rely on data sets that might be vulnerable to data poisoning, data tampering, data bias or cyberattacks that can lead to data breaches. Organizations can mitigate these risks by protecting data integrity and implementing security and availability throughout the entire AI lifecycle, from development to training and deployment and postdeployment.

Model risks  

Threat actors can target AI models for theft, reverse engineering or unauthorized manipulation. Attackers might compromise a model’s integrity by tampering with its architecture, weights or parameters; the core components that determine a model’s behavior, accuracy and performance.

Operational risks  

Like all technologies, models are susceptible to operational risks such as model drift, bias and breakdowns in the governance structure. Left unaddressed, these risks can lead to system failures and cybersecurity vulnerabilities that threat actors can use.

Ethics and legal risks  

If organizations don’t prioritize safety and ethics when developing and deploying AI systems, they risk committing privacy violations and producing biased outcomes. For example, biased training data used for hiring decisions might reinforce gender or racial stereotypes and create AI models that favor certain demographic groups over others.  

AI ethics is a multidisciplinary field that studies how to optimize AI's beneficial impact while reducing risks and adverse outcomes. Principles of AI ethics are applied through a system of AI governance consisted of guardrails that help ensure that AI tools and systems remain safe and ethical.  

AI governance encompasses oversight mechanisms that address risks. An ethical approach to AI governance requires the involvement of a wide range of stakeholders, including developers, users, policymakers and ethicists, helping to ensure that AI-related systems are developed and used to align with society's values.

Here are common values associated with AI ethics and responsible AI :

As AI becomes more advanced, humans are challenged to comprehend and retrace how the algorithm came to a result. Explainable AI is a set of processes and methods that enables human users to interpret, comprehend and trust the results and output created by algorithms.

Although machine learning, by its very nature, is a form of statistical discrimination, the discrimination becomes objectionable when it places privileged groups at systematic advantage and certain unprivileged groups at systematic disadvantage, potentially causing varied harms. To encourage fairness, practitioners can try to minimize algorithmic bias across data collection and model design, and to build more diverse and inclusive teams.

Robust AI effectively handles exceptional conditions, such as abnormalities in input or malicious attacks, without causing unintentional harm. It is also built to withstand intentional and unintentional interference by protecting against exposed vulnerabilities.

Organizations should implement clear responsibilities and governance structures for the development, deployment and outcomes of AI systems. In addition, users should be able to see how an AI service works, evaluate its functionality, and comprehend its strengths and limitations. Increased transparency provides information for AI consumers to better understand how the AI model or service was created.

Many regulatory frameworks, including GDPR, mandate that organizations abide by certain privacy principles when processing personal information. It is crucial to be able to protect AI models that might contain personal information, control what data goes into the model in the first place, and to build adaptable systems that can adjust to changes in regulation and attitudes around AI ethics.

In order to contextualize the use of AI at various levels of complexity and sophistication, researchers have defined several types of AI that refer to its level of sophistication:

Weak AI : Also known as “narrow AI,” defines AI systems designed to perform a specific task or a set of tasks. Examples might include “smart” voice assistant apps, such as Amazon’s Alexa, Apple’s Siri, a social media chatbot or the autonomous vehicles promised by Tesla. 

Strong AI : Also known as “artificial general intelligence” (AGI) or “general AI,” possess the ability to understand, learn and apply knowledge across a wide range of tasks at a level equal to or surpassing human intelligence . This level of AI is currently theoretical and no known AI systems approach this level of sophistication. Researchers argue that if AGI is even possible, it requires major increases in computing power. Despite recent advances in AI development, self-aware AI systems of science fiction remain firmly in that realm. 

The idea of "a machine that thinks" dates back to ancient Greece. But since the advent of electronic computing (and relative to some of the topics discussed in this article) important events and milestones in the evolution of AI include the following:

1950 Alan Turing publishes Computing Machinery and Intelligence (link resides outside ibm.com). In this paper, Turing—famous for breaking the German ENIGMA code during WWII and often referred to as the "father of computer science"—asks the following question: "Can machines think?" 

From there, he offers a test, now famously known as the "Turing Test," where a human interrogator would try to distinguish between a computer and human text response. While this test has undergone much scrutiny since it was published, it remains an important part of the history of AI, and an ongoing concept within philosophy as it uses ideas around linguistics. 

1956 John McCarthy coins the term "artificial intelligence" at the first-ever AI conference at Dartmouth College. (McCarthy went on to invent the Lisp language.) Later that year, Allen Newell, J.C. Shaw and Herbert Simon create the Logic Theorist, the first-ever running AI computer program.

1967 Frank Rosenblatt builds the Mark 1 Perceptron, the first computer based on a neural network that "learned" through trial and error. Just a year later, Marvin Minsky and Seymour Papert publish a book titled Perceptrons, which becomes both the landmark work on neural networks and, at least for a while, an argument against future neural network research initiatives. 

1980 Neural networks, which use a backpropagation algorithm to train itself, became widely used in AI applications.

1995 Stuart Russell and Peter Norvig publish Artificial Intelligence: A Modern Approach (link resides outside ibm.com), which becomes one of the leading textbooks in the study of AI. In it, they delve into four potential goals or definitions of AI, which differentiates computer systems based on rationality and thinking versus acting. 

1997 IBM's Deep Blue beats then world chess champion Garry Kasparov, in a chess match (and rematch).

2004 John McCarthy writes a paper, What Is Artificial Intelligence? (link resides outside ibm.com), and proposes an often-cited definition of AI. By this time, the era of big data and cloud computing is underway, enabling organizations to manage ever-larger data estates, which will one day be used to train AI models. 

2011 IBM Watson® beats champions Ken Jennings and Brad Rutter at Jeopardy! Also, around this time, data science begins to emerge as a popular discipline.

2015 Baidu's Minwa supercomputer uses a special deep neural network called a convolutional neural network to identify and categorize images with a higher rate of accuracy than the average human. 

2016 DeepMind's AlphaGo program, powered by a deep neural network, beats Lee Sodol, the world champion Go player, in a five-game match. The victory is significant given the huge number of possible moves as the game progresses (over 14.5 trillion after just four moves). Later, Google purchased DeepMind for a reported USD 400 million.

2022 A rise in large language models  or LLMs, such as OpenAI’s ChatGPT, creates an enormous change in performance of AI and its potential to drive enterprise value. With these new generative AI practices, deep-learning models can be pretrained on large amounts of data.

2024 The latest AI trends point to a continuing AI renaissance. Multimodal models that can take multiple types of data as input are providing richer, more robust experiences. These models bring together computer vision image recognition and NLP speech recognition capabilities. Smaller models are also making strides in an age of diminishing returns with massive models with large parameter counts.

Artificial intelligence (AI), which enables machines to perform advanced, humanlike functions, promises breakthroughs across society—in health care, transportation, education, finance, and beyond. At their best, AI tools perform tasks at a much greater speed, scale, or degree of accuracy than humans—freeing up time and resources for us to solve problems that machines cannot. Chatbots can provide support around the clock; crawlers can scour websites and databases for information; self-driving cars hold the potential to make commutes safer and more efficient.

But the technology is not without its perils. One striking example happened in 2019, when researchers found that a predictive algorithm used by UnitedHealth Group was biased against Black patients. In using health care spending as a proxy for illness, the tool inadvertently perpetuated systemic inequities that have historically kept Black patients from receiving adequate care (Obermeyer, Z., et al., Science , Vol. 366, No. 6464, 2019).

“Algorithms are created by people who have their own values, morals, assumptions, and explicit and implicit biases about the world, and those biases can influence the way AI models function,” said Nicol Turner-Lee, PhD, a sociologist and director of the Center for Technology Innovation at the Brookings Institution in Washington, D.C. Because of these ongoing concerns about equity, privacy, and trust, there’s a growing recognition among researchers and industry experts that responsible innovation requires a sophisticated understanding of human behavior. To that end, psychologists are helping develop and deploy AI software and technologies, including everything from therapeutic chatbots to facial-recognition systems. They’re also amassing a robust literature on human-computer interaction, digital therapeutics, and the ethics of automation.

“As we are developing these emerging technologies, we have to ask ourselves: How will societies interact with them?” said psychologist Arathi Sethumadhavan, PhD, principal research manager on Microsoft’s ethics and society team. “That’s where psychologists come into play, because we are very good at understanding people’s behaviors, motivations, and perceptual and cognitive capabilities and limitations.”

From model to market

Building the algorithms that fuel AI technologies may sound like the sole domain of computer scientists, but psychologists who study intelligence in humans are also helping unlock ways to enhance intelligence in machines.

For example, AI systems often struggle to make informed guesses about things they haven’t seen before—something that even young children can do well. In a series of studies comparing the way children and machines learn, Alison Gopnik, PhD, a professor of psychology and affiliate professor of philosophy at the University of California, Berkeley, and her colleagues have found that kids surpass AI systems in several areas, including exploratory learning, social learning, and building mental models ( Scientific American , June 2017).

She is now working with computer scientists Pulkit Agrawal, PhD, of the Massachusetts Institute of Technology, and Deepak Pathak, PhD, of Carnegie Mellon University, to adapt AI technologies in light of those findings. Among other things, Gopnik’s team is looking at how humans can make machines more playful and curious about the world around them.

Pathak and Agrawal have programmed an agent to investigate and model unknown parts of virtual environments; using this technique, it can perfectly master a Mario Brothers game. But one persistent problem is that machines have trouble distinguishing random, unpredictable noise—such as a square of static—from interesting but surprising new events. Children, on the other hand, excel at separating relevant new information from irrelevant noise.

“That’s the big challenge now,” Gopnik said. “Can we figure out how to make AI not just curious but curious about the right kinds of things?”

These algorithms eventually evolve into products that people use, opening up a host of new promises and perils, which psychologists are also exploring. At Microsoft, Sethumadhavan conducts qualitative and quantitative research to understand how people perceive AI technologies, then she incorporates those insights into product development.

For example, participants in a recent study of facial-recognition technology perceived advantages to the technology for building access and airport screening—because of clear safety and efficiency gains—but were less bullish on its use for employee monitoring or for providing personalized assistance in retail environments.

“Human beings, when given the time, are always doing a value exchange, weighing the benefits to them and what they are giving up in return,” Sethumadhavan said, adding that the findings can help developers to consider the contexts of use prior to deploying emerging AI technologies and to build the appropriate level of trust with users.

In addition to studying end users, Sethumadhavan’s team documents attitudes of impacted stakeholders. When developing Microsoft’s synthetic speech technology, she interviewed voice actors to understand how the technology could affect their livelihoods. As a result, Microsoft now requires customers of the service to obtain informed consent from any voice actors they employ.

“Ethical product development is not a box to check, but understanding the needs and concerns of your end users and other impacted stakeholders actually helps you innovate better,” she said.

Self-driving cars, which promise major safety and efficiency gains, rely on AI to perceive, interpret, and respond to road conditions and hazards. According to a report by the RAND Corporation, autonomous vehicles can save hundreds of thousands more lives if they are deployed en masse when they are 10% safer than the average human driver rather than waiting until they have nearly perfect safety records (Kalra, N., & Groves, D. G., The Enemy of Good , 2017). But getting the public on board may involve as many psychological roadblocks as technical ones, said Azim Shariff, PhD, an associate professor of psychology at the University of British Columbia who studies human-computer interaction and the ethics of automation.

Shariff’s research indicates that people demand much higher levels of safety from autonomous vehicles than from those operated by humans ( Transportation Research Part C: Emerging Technologies , Vol. 126, 2021). This is due in part to “algorithm aversion”—our tendency to distrust decisions made by algorithms—and the “better than average” effect, where we overestimate our abilities compared with the general population (“Self-driving cars may be 10% better than average, but I’m 20% better”).

In fact, a focus on the safety gains associated with self-driving cars could backfire, said Shariff, because people also exhibit a “betrayal aversion,” or a reluctance to risk potential harm by something meant to enhance their safety.

“People really don’t like being hurt by things that are supposed to keep them safe,” he said. “If self-driving cars are sold primarily as safety mechanisms, people will overreact every time there’s an accident.”

On the other hand, Gopnik argues that designing safe and effective self-driving cars may be more complicated than we once thought—and require insights not just from physics but also from social psychology.

“Most of what people do when they drive is this amazing social coordination effort,” she said. “Getting machines to do things that may seem straightforward actually requires a much more sophisticated understanding of the world and each other than we initially realized.”

An adjunct, not an alternative

Ethical and behavioral considerations are just as important in the mental health care space, where AI tools serve two primary functions. Some algorithms operate behind the scenes to predict health risks or recommend personalized treatment plans and others interface directly with patients in the form of therapeutic chatbots.

The smartphone application Woebot, for example, uses machine learning and natural language processing to deliver cognitive behavioral therapy (CBT) to tens of thousands of daily users. By exchanging short text messages with a chatbot, users can address stress, relationship problems, and other concerns by learning about CBT concepts such as overgeneralization and all-or-nothing thinking (Fitzpatrick, K. K., et al., JMIR Mental Health , Vol. 4, No. 2, 2017).

Behind the scenes, AI technology fuels hundreds of therapeutic programs, such as the online therapy platform Talkspace, which has developed a suicide alert system that uses natural language processing to analyze written communication between patients and their therapists (Bantilan, N., et al., Psychotherapy Research , Vol. 31, No. 3, 2021) and is testing AI interventions for post-traumatic stress disorder (Malgaroli, M., et al., Journal of Medical Internet Research , Vol. 22, No. 4, 2020).

Some AI-based programs—including EndeavorRx, a video game designed to treat attention-deficit/hyperactivity disorder—have even received clearance from the U.S. Food and Drug Administration for use under medical supervision (Kollins, S. H., et al., npj Digital Medicine , Vol. 4, 2021).

Most psychologists see AI technologies as an adjunct, rather than an alternative, to traditional psychological treatment. “We’re not trying to replace therapists—there’s no replacement for human connection,” said psychologist Alison Darcy, PhD, the founder and president of Woebot Health. “But we can rethink some of the tools that have traditionally been the unique domain of the clinic and design them so that they are more accessible.”

AI therapeutic tools offer a few clear advantages over traditional mental health care. Machines are available 24 hours a day, they never get tired, they have an encyclopedic knowledge of the psychological literature, and they remember every interaction they’ve had with a client, said psychologist Skip Rizzo, PhD, director for medical virtual reality at the University of Southern California’s Institute for Creative Technologies . They can deliver treatments in real time and can be customized to meet a client’s preferences, including to enhance cultural competence. Digital therapeutic tools can also greatly lower the barriers to accessing mental health care by reducing cost and stigma.

But digital mental health is still a “wild west” in the nascent stages of research, application, and ethical issues, said David Luxton, PhD, a clinical psychologist and an affiliate associate professor at the University of Washington’s School of Medicine. Safety and efficacy are chief concerns, Rizzo added. Most platforms direct users toward support resources during a suspected mental health crisis—and include prominent disclaimers about intended use—but some people may still regard these tools as a substitute for therapy ( Professional Psychology: Research and Practice , Vol. 45, No. 5, 2014).

“An app may be based on CBT, but that doesn’t mean that the app itself is evidence-based,” Luxton said. “People who are using it without a licensed therapist may be relying on something untested that could actually cause harm.”

Another problem afflicting both digital therapeutics and other AI products is “algorithmic bias”—when models make biased predictions because of limitations in the training data set or assumptions made by a programmer. Women, Black people, and Hispanic people are underrepresented in the field of computer science , and homogenous programming teams are more likely to make errors, for example making assumptions about educational attainment or health care access, that result in biased AI (Cowgill, B., et al., Proceedings of the 21st ACM Conference on Economics and Computation , 2020). But social scientists can anticipate such assumptions and help developers understand the lived experiences of populations represented in various data sets, said Turner-Lee.

“This is especially important when algorithms are applied in ‘sensitive use’ cases, including credit, employment, education, and health care,” she said.

On the other hand, AI models may hold the power to reduce health disparities. For example, osteoarthritis tends to be more painful for Black patients than non-Black patients, but standard tests only explain 9% of that variance. When a team of researchers used a machine learning algorithm—rather than a human grader—to analyze patients’ knee X-rays, they found physical indicators that explained 43% of the racial disparity in pain (Pierson, E., et al., Nature Medicine , Vol. 27, 2021).

Understanding how humans interact with technology is also key to the success of mental health chatbots. We know that a primary driver of change in therapy is the therapeutic relationship, but in the case of digital therapeutics, that relationship is between a human and a computer. Early research suggests that users can benefit from making emotional disclosures to a bot (Ho, A., et al., Journal of Communication , Vol. 68, No. 4, 2018) and even form a therapeutic bond (Darcy, A., et al., JMIR Formative Research , Vol. 5, No. 5, 2021). Thomas Derrick Hull, PhD, a psychologist who works with Talkspace and the behavioral weight-loss platform Noom, has also found that users tend to prefer interacting with chatbots when they aren’t disguised as humans.

Hull and his colleagues are exploring ways for AI technology to further enhance the process of psychotherapy by using the vast archives of anonymized data collected during Talkspace sessions. For example, natural language processing may be able to identify speech patterns that indicate a breakdown in the therapeutic alliance. A similar algorithm could compare session transcripts with treatment plans and nudge therapists to revisit a topic of concern with a client. AI also holds promise for improving the patient-therapist match, said Hull. By querying vast data sets, researchers may be able to better operationalize client characteristics, therapist characteristics, and what constitutes an ideal match.

“The qualities that make both patients and clinicians unique are critical in the context of treatment,” Hull said. “These characteristics are, however, understudied because the number and complexity is more than we could realistically track, model, and compare. AI can change that.”

Still, privacy concerns remain where data mining is concerned. In 2020, The New York Times reported that Talkspace executives read excerpts from therapy sessions during a company meeting without maintaining anonymity for the patient, who was an employee of the organization. Talkspace maintains it obtained the full consent of the client. APA’s Ethics Code and the Health Insurance Portability and Accountability Act require that health care data be fully de-identified before it is shared in order to preserve patient confidentiality.

“It behooves these companies to be very clear about what data might be mined and how they plan to use it,” said Deborah Baker, JD, APA’s director of legal and regulatory policy.

The next frontier

As increasingly sophisticated AI technologies—including autonomous weapons and emotion-detection software—continue to emerge, psychologists have an important role to play in launching them both effectively and responsibly.

For mental health care, the next frontier involves merging facial recognition, natural language processing, and ­emotion-detection algorithms to make complex assessments about mood and mental states, said Matteo Malgaroli, PhD, a clinical psychologist and assistant professor at New York University’s Grossman School of Medicine. These technologies are already being applied in marketing contexts, where the stakes are significantly lower.

“If you don’t buy my hamburger, I might lose a few dollars,” he said. “But if somebody makes a wrong assessment of depression, that can have very serious consequences.”

For that reason, it’s essential that psychologists participate in the development of clinical AI technologies to ensure algorithms capture data and deliver outcomes that are consistent with validated psychological practices, Malgaroli said.

Moving forward, AI holds the potential to empower traditionally marginalized populations, Sethumadhavan said. In an ongoing fellowship with the World Economic Forum’s AI and machine learning team, she is exploring how the technology can help meet the needs of the aging population, which will exceed 1.6 billion by 2050. AI may ultimately help address social isolation, transportation and mobility, mental and physical health, caregiver burden, and end-of-life planning for this group ( AI and Ageing , World Economic Forum, 2021).

Ultimately, APA’s Ethics Code will help psychologists proceed with caution amid the growing questions about equity, security, and surveillance raised by AI technology.

“If the end user doesn’t trust the system, then it’s not going to work,” Luxton said. “Violating that trust risks the reputation of our entire profession.”

What is artificial intelligence?

AI technologies analyze massive amounts of information from their environments to solve problems with high levels of certainty.

Deep learning algorithms search for patterns in very large data sets to recognize variables that co-occur—for example, the content of a person’s text messages and the likelihood of a subsequent depressive episode.

Reinforcement learning systems complete many trials of a task (for instance, distinguishing between images of cats and dogs) to develop expertise.

Developers use a range of mathematical validation techniques to check whether their models are making accurate predictions about the real world. For example, it’s standard to test an algorithm on an existing data set with known outputs and then measure the model’s hit rate.

Common applications of AI include perceiving and responding to visual stimuli (“computer vision”), interpreting and producing human speech (“natural language processing”), and identifying patterns in very large data sets (“machine learning”).

Artificial intelligence for science: The easy and hard problems

A suite of impressive scientific discoveries have been driven by recent advances in artificial intelligence (AI). These almost all result from training flexible algorithms to solve difficult optimization problems specified in advance by teams of domain scientists and engineers with access to large amounts of data. Although extremely useful, this kind of problem solving only corresponds to one part of science—the “easy problem.” The other part of scientific research is coming up with the problem itself—the “hard problem.” Solving the hard problem is beyond the capacities of current algorithms for scientific discovery because it requires continual conceptual revision based on poorly defined constraints. We can make progress on understanding how humans solve the hard problem by studying the cognitive science of scientists, and then use the results to design new computational agents that automatically infer and update their scientific paradigms.

The easy problem

Most work applying AI to science has focused on what might be called the “easy problem.” This is a relative term, since the easy problem is actually quite hard. A scientist specifies a function that they want to optimize (e.g., a function that generates a protein’s structure given its amino acid sequence). Included in the specification is the input for the function (e.g., the amino acid sequence), the output (e.g., the 3D structure), and a way to compare the function’s output with the ground truth (e.g., the average 3D distance of an amino acid residue from where it should be). The scientist then finds or collects a dataset, usually very large, with examples of the ground truth; or, designs some other way of assessing the model’s output (e.g., turbulence parameters in plasma flow). AI optimization tools can then be applied to this problem. So far, this kind of application has been highly successful, with new discoveries of tertiary protein structures, antibiotics, and nuclear fusion reactor designs (see [ 1 ] for a recent review).

What makes this problem “easy” is not the form of the solution (which may require a great deal of engineering work) but rather the form of the problem. It is clear from the beginning what needs to be optimized, and what kinds of tools can be brought to bear on this problem. The engineering breakthrough comes from building much better versions of these tools. In other words, the problem is relatively easy because it does not require any conceptual breakthroughs of the sort involved in the discovery of relativity theory, genetics, or the periodic table.

Are these conceptual breakthroughs just patterns that can be discovered with a sufficiently powerful pattern recognition system? In a sense yes, but before that can happen, something has to tell the pattern recognition system what kind of patterns are interesting, important, and useful. What problem is the pattern-recognition system designed to solve, and where does this come from?

The hard problem

The fundamental barrier to automating science is conceptual. Great scientists are not simply extraordinary optimizers of ordinary optimization problems. It is not like Einstein had a better function approximator in his brain than his peers did; or Mendeleev’s brain had a better version of backprop. More commonly, great scientists are ordinary optimizers of extraordinary optimization problems. It is the formulation of the problem, not its solution, that is the truly hard problem: The hard problem is the “problem problem.”

One might be tempted to relegate the hard problem to the fringes of “revolutionary science,” which rarely erupt into mainstream scientific practice, whereas the easy problem occupies the focus of the “normal science” that scientists spend most of their time on [ 2 ] . However, normal science is not simply optimization. This is obvious to any first-year graduate student trying to figure out what to work on. Normal science isn’t a catalog of optimization problems waiting to be solved by a queue of grad students. Their fundamental barrier is the same one facing AI scientists: It is the conceptual problem of formulating an optimization problem. This encompasses both major conceptual breakthroughs, like relativity theory, and the more modest ones achieved by graduate students on a regular basis, which nonetheless remain out of reach for existing AI systems.

The problem with optimization

Much of the classic work on AI science (mainly by Simon, Langley, and their collaborators [ 3 , 4 , 5 ] , but also more recently by Schmidt & Lipson [ 6 ] , Udrescu & Tegmark [ 7 ] , and others [ 8 ] ) focused on the easy problem. For Simon and Langley, this approach was premised on the psychological thesis that scientific cognition was essentially the same as regular problem solving, only applied to a different (and sometimes more challenging) set of problems. Consequently, they developed algorithms that emulated human problem solving, and applied these to scientific discovery.

Existing AI scientists have had some success at the easy problem. Simon, Langley, and others were able to solve a range of seminal science problems [ 9 ] , including the (re-)discovery of oxygen with STAHLp [ 10 ] ; more modern methods for automated physics have inferred many existing and novel laws, including classical and quantum problems with AI Feynman and non-linear dynamical systems with SINDy [ 7 , 8 ] ; and, discovery algorithms in biology have advanced our ability to solve many difficult problems, including AlphaFold2 for protein folding [ 11 ] .

This success is analogous to the earliest use of computers, in which they were used to complete calculations too laborious for any human (such as in the Enigma cryptography project in World War II; or, to prove all edge cases of a complicated theorem [ 12 ] ). Algorithms that solve the easy problems of science are useful, even essential, to progress. For example, there is an increasing discrepancy between the number of amino-acid sequences that are discovered in biology and the recovery of the 3D protein structures they correspond to using the experimental method.

While recognizing the importance of such algorithms, we should also recognize their limitations. Several decades ago, Chalmers, French, & Hofstadter (focusing on the models of Simon, Langley, and their collaborators) challenged the idea that this kind of optimization was a complete model of scientific discovery and investigation [ 13 ] . Systems like STAHLp are only able to solve scientific problems and make discoveries, they argued, because the modelers have represented the inputs and outputs to the problem in hindsight ; only relevant data have been included and those data are already organized such that the proposed heuristics will be able to easily extract the right solution. In other words, they have been provided a representation of the scientific problem that already includes the basic primitives needed for the final theory, but skirt the central problem of representation itself: Where do the primitives come from, and how do we know if we have discovered the right ones?

Simon insisted (contra Popper [ 14 ] ) that there was a logic of scientific discovery, but Simon’s proposal was really a logic of scientific problem solving—how to sequentially search through hypotheses given a problem statement and primitive representations [ 3 ] . This is not discovery in the sense of problem creation. The latter involves representation learning in service of the problem, but also something deeper: Identification of the goal or objective function itself.

In machine learning terms, these systems might be extremely good at interpolation, and they may become better at extrapolation to new data, but they will never automatically generate or choose to investigate new scientific problems. This is because neither the inferential nor the learned components of the algorithm contain the knowledge necessary to do so. Instead, that knowledge came from the team that specified the problem by choosing how to represent the inputs, outputs, and objective function.

Problem representation

The representation of input data involves two fundamental choices—which are the right primitive variables and which datapoints to include. In trying to emulate the investigative processes of scientists, it is important to consider the primitives they would have begun with. The representation chosen for the inputs cannot be too permissive—it cannot use concepts or data that scientists came up with in the course of solving the problem; nor too restrictive—it cannot exclude concepts or data that the would have originally affected the problem-solving process.

The output for a scientific problem comprises the scientific theory and any predictions it generates. This choice of representation determines which theories are considered “well-formed” and therefore valid solutions for the problem. The output representation can be defined either explicitly, in the form of a set of symbols and operations, or implicitly, through the space of operations that can be applied to the input variables. Modeling the full scientific process requires specifying a generative system for theories that has sufficient flexibility for conceptual change, which in turn might affect the space of theories that are considered well-formed.

The third component of a problem representation is the goal, expressed in the language of optimization as a loss function that assesses the adequacy of a solution compared to the “ground-truth.” The choice of loss function corresponds closely to the way the modeler has chosen to represent the structure of the natural domain. For example, when providing deterministic physical models for cosmically short distances, loss functions based on Euclidean distance might be suitable; for classification models, some assessment of decision accuracy; for probabilistic models, a loss based on relative entropy. The choice of loss is also influenced by the cognitive biases of scientists themselves. A classic finding from cognitive science is that for perceptual stimuli with separable feature dimensions participants’ generalizations are better captured with a Manhattan loss, in contrast to a Euclidean loss for stimuli with integral dimensions [ 15 ] .

Solving the hard problem

In contemplating how to build AI systems that solve the hard problem, it is instructive to look at how human scientists do it. The high-level objective in science is clear: We would like to account for more data with our theories. At this level, human scientists break the hard problem down into several sub-problems:

Domain specification. What are the relevant phenomena that need to be explained by a theory?

Constraint specification. What kinds of constraints need to be imposed on a theory based on existing knowledge (both domain-specific and domain-general)?

Once the domain and constraints have been specified, we can define an optimization problem (theory search); hence, we have converted the hard problem into the easy problem. For most current AI scientists, the modeling team conducts domain specification in advance in the representation and selection of data, and constraint specification in the representational scheme for potential scientific theories (outputs) and the objective function that assesses them. However, it is uncommon for real scientists to do a single pass from hard to easy, because they often realize that the problem they are solving is the wrong one. This may happen for several reasons. One is the realization that a theory is internally inconsistent or paradoxical. Another is the realization that the theory may (with suitable modification) be able to explain a broader range of phenomena, prompting a respecification of the domain. Conversely, phenomena which were previously included in a domain may need to be excluded if no adequate unifying theory is found for all the phenomena. Respecification can also happen when new empirical phenomena are reported. In a related vein, constraint respecification can happen when domains are merged, split, expanded, or shrunk. The key point is that problem creation and problem solving are cyclically coupled in scientific practice.

In the following sections, we motivate the distinction between the easy and hard problems with three case studies from the birth of modern chemistry, physics, and molecular biology. For each case study, we summarize the elements of the problem, the historical setting, and modern computational systems that have tried to recapture some aspects of these discoveries. We will argue that none of these modern systems offers a complete solution to the hard problem.

Case study 1: The discovery of oxygen

In the 18th century, it had been observed that lead increased in weight when it was slowly heated (which today we call “oxidation,” but at that time was called “calcination”). This was difficult to explain with contemporary chemical theories, because they posited that something left a metal when it was heated (a type of inflammable earth called “phlogiston”). In 1774, the English chemist Joseph Priestley collected and identified a particularly inflammable and respirable form of air following the thermal reduction of calx-of-mercury (mercury-oxide) [ 16 ] . The French chemist Antoine Lavoisier eventually called this air “oxygen,” and posited that it went into the metal during calcination instead, causing the weight change [ 17 ] . Lavoisier’s course of investigations were so successful that he has been credited as having started the Chemical Revolution and introduced the principled application of the conservation of mass into the quantitative sciences.

Rose and Langley proposed a computational model called STAHLp to account for the discovery of the role of oxygen in calcination reactions [ 10 ] (see Box 1).

The input to STAHLp is a set of interconnected beliefs about 1) which substances are present before and after a particular reaction or 2) the chemical composition of each substance. These inputs are encoded using two types of variable: The functions (or programs) REACTS and COMPOSED OF, which operate on an unbounded space of discrete chemical names.

STAHLp’s desired output is a coherent and consistent “theory”—a set of beliefs that entail the inputs and do not contradict each other. STAHLp uses a hard objective function to enforce this: The theory cannot contain any inconsistent equations containing “nil” (the empty set).

STAHLp solves this problem by applying a set of “production rules” to its beliefs at each step, generating further beliefs. If the system generates an inconsistent belief, STAHLp throws an error. At that point, a second set of “belief revision” heuristics is applied to try to identify the source of the inconsistency and correct it. After the lowest-cost correction is made, STAHLp applies its production rules to generate the updated theory entailed by the new starting beliefs. The algorithm keeps running until no remaining beliefs are or an inconsistency has been detected; this is what Simon meant by scientific problem-solving as search through a hypothesis space [ 3 ] .

Rose and Langley showed that for a particular pair of beliefs STAHLp “discovers” oxygen (see Figure 1 ). In particular, the first belief, inherited from Georg Ernst Stahl, states that mercury is composed of calx-of-mercury and phlogiston. The second, reflecting an empirical observation by Joseph Priestley, states that calx-of-mercury is composed of mercury and a colorless gas.

When STAHLp’s production rules are applied to these observations, they produce an inconsistent belief—mercury-calx can be decomposed into itself, phlogiston, and oxygen (a circularity present in the two starting observations), which is then reduced to a statement containing nil on the left-hand side.

The update-belief rules are triggered, generating a set of “effect hypotheses” that “balance” the inconsistent belief (belief 4 in Figure 1 ):

By back-tracing where the left and right sides come from, STAHLp can generate “cause-hypotheses” about how the initials beliefs should be updated. The cause-hypothesis that affect the least downstream statements is chosen—in this case the addition of “oxygen” to the left hand side of belief 1 .

STAHLp: Analysis

It is hard to argue with the assumption that reactions and compositions of substances were the central concepts in chemistry—indeed, this was how Stahl himself defined its scope [ 18 ] . However, leading up to the chemical revolution, chemists had a different way of thinking about the internal structure of substances, in which observable substances arose from mixtures of the latent primitives of earth, water, and fire. A new name could not be added arbitrarily, and had to be placed within the existing ontological structure. Second, they would not have considered air—what we now call gas—to have chemical properties and enter into chemical combinations: The discrete name representation is too permissive, and “oxygen” is simply not a valid entry [ 19 ] .

It also excludes relevant data. Most of the scientific work leading up to the discovery of oxygen was concerned with the sensory properties of substances, 1 1 1 appearance, taste, feel and ductility and smell. where they came from, 2 2 2 the sea, the animal kingdom, mining, etc. and their weight. For example, there was actually a great deal of inconclusive or even negative evidence that metals apart from lead increased weight on calcination, detracting from the general statement that an air entered into metals. Similar arguments can be put forward for using a single function to represent a number of different reactions.

There is also the question of data selection. The creators of STAHLp include only two facts from the many heterogenous and often inconsistent observations and beliefs in 18th century chemistry. If they took into account others—for example, that when nitrous acid was poured on mercury colored vapors and fumes were given off—the model’s conclusions may well have changed.

Finally, the objective function for STAHLp is based on the detection of nil statements. Once again, this is a retrospective assumption that relies on the application of the conservation of mass. By contrast, in the 18th century it was widely held that substances could dissipate away to nothing—from diamond [ 19 ] , to phlogiston itself [ 20 ] . Lavoisier had to create the right conceptual framework needed to support the use of equations in his investigations before using them.

Historical perspective: Lavoisier and the discovery of oxygen

Instead of being bound by a fixed type structure, Lavoisier made a number of conceptual innovations that were closely informed by the ontological structure of chemical knowledge [ 21 ] . The first was that “air” (what we would now call gas) could be involved in chemical reactions at all. Robert Boyle and others had offered a physical interpretation of air and derived various laws. But, as surprising as it sounds today, in Continental Europe air was not thought to enter into chemical combinations—it was not a chemical type. By including air in the “definitions of chemistry,” Lavoisier respecified the domain to include gross changes in air volume, and in turn explained the gross weight changes in calcination by the chemical fixation of air.

Next, Lavoisier broadened his scope to include all operations that fix or release air [ 22 ] , with the aim of tracing the flow of air and water through different coupled reactions in order to infer the chemical composition of a more complex substance (like chalk). This richer set of data, including previous analyses by the Scottish chemist Joseph Black, led to the development of quantitative models based on equations. Prior to Lavoisier, chemists categorized and weighed solids and liquids before and after reactions, but did not routinely measure the air surrounding these materials. So, their “equations” seldom balanced, and the conservation of mass was used more as a post-hoc and abstract principle rather than a tool for quantitative purposes. Lavoisier developed the conceptual machinery to represent a reaction in terms of the total weight of materials at the start and end, and in doing so established the loss function to be optimized—the inference of a consistent and useful set of equations. In other words, he constructed the right representation of the problem. This placed emphasis on the use of a density constant to relate changes in air volume to changes in weight.

Discrepancies in subsequent experiments led Lavoisier to the conclusion that there must be different subtypes of air with different densities. This led to the development of new equipment to measure those densities, and ultimately the finding that the air of the atmosphere was in fact a composite of these subtypes, rather than an elemental root. He then showed that the reduction of calx-of-mercury with charcoal produced a different air (carbon monoxide and carbon dioxide) than the reduction of calx-of-mercury without charcoal, eventually calling the latter air “oxygen.” Lavoisier explained the differences between these two reactions by positing an underlying, potentially infinite range of chemical primitives that could take the familiar three states of matter depending on how much of the “matter of fire” was coupled with them. This was the beginning of the main Chemical Revolution—actually more of an inversion, in that the things previously considered elemental (earth, water, air, fire) were now considered complex, whereas previously complex things like carbon were now considered elemental.

Case Study 2: The electromagnetic field

By the middle of the 19th century, Michael Faraday had published a set of discoveries and observations related to electromagnetic induction: A current could be generated in a conducting wire in the presence of a strong permanent magnet by moving the magnet or the wire. Faraday recorded the intensity of magnetic force surrounding magnets of various shapes, strengths, and number, as well as electrical circuits, arguing that the most useful representation for these data was in terms of lines of magnetic force [ 23 ] . He had speculated on what might be the cause of these patterns, but had been largely unsuccessful [ 24 ] . The Scottish physicist James Clerk Maxwell derived a brilliant and creative theoretical solution to this problem that provides the foundation of modern physics—the mathematical representation of the electromagnetic field.

No computational model has been proposed to emulate Maxwell’s discovery. However, several influential models target the general setting of deriving physical laws from datasets of this sort [ 7 , 8 , 6 ] . Here we will focus on AI Feynman [ 7 ] , an algorithm that uses symbolic regression to recover natural laws from physical data (see Box 2).

The input for AI Feynman is a data table, comprising data samples (rows) of a dependent variable and several independent variables (columns) that the modeler has specified in advance for each problem . Variables take continuous values, correspond to measurements of the physical system, and are augmented with type information representing their fundamental physical units (meter, second, kilogram, kelvin, and volt.).

AI Feynman outputs predictions that match the dimensionality and type structure of the input, as well as a symbolic formula representing a theory of the observed system. The objective function uses a squared-error loss to assess predictions in the input space and a hard loss on whether its current solution is equivalent to the ground-truth expression.

AI Feynman cycles through a set of computational strategies premised on commonalities in the functional forms of solutions to known physical problems (Figure Historical perspective: Maxwell and the electromagnetic field concept ). The inputs and outputs to physical problems tend to have units, which justifies algebraic manipulations based on their types (dimensional analysis). Solutions, or parts thereof, often contain polynomial expressions, justifying polynomial fitting; they tend to be compositional, justifying search over symbolic expressions; they tend to be smooth, justifying approximation by a neural networks; they tend to exhibit symmetry and separability, allowing a reduction of variables after transformation by the neural network components. If nothing else works, a fixed set of transformations are applied to the variables, including the transcendental functions.

For example, the data in “mystery table 5” comprises samples from one dependent variable, F 𝐹 F italic_F , and nine independent variables corresponding to the masses and 3D positions of two objects, and Newton’s constant G 𝐺 G italic_G . The algorithm runs through its pre-determined steps: Algebraic manipulations yield a reduced set of dimensionless variables; the application of a neural network component identifies translational symmetry; a good factorization is found; then polynomials are fit to two subsets of transformed variables. The end result of this process is an equation that accounts for the data below some error threshold, ϵ italic-ϵ \epsilon italic_ϵ (see Figure Historical perspective: Maxwell and the electromagnetic field concept ).

AI Feynman: Analysis

Although the choice of input variables for AI Feynman might seem logical, they in fact correspond to quite an advanced stage of problem solving—when scientists have already constructed an idealized model for the system at hand. 3 3 3 This is the process that Richard Feynman went through in his lectures when giving the historical background of the problem statement. For example, Newton had to posit the idea of a gravitational constant, expressed implicitly in terms of proportionality; and he had to posit that these were the only influential factors when explaining gravity—that action-at-a-distance was the correct framework to use, rather than the transmission of forces through an underlying medium. Similarly, Maxwell invented dimensional analysis to help solve difficult physics problems. But he did not always choose this representation—for electromagnetism, for example, he chose to think about dynamical properties of the aether.

There is also the question of which datapoints are chosen. For mystery table 5, the data are not taken from systems far from the scientist or near large masses, where the behavior of light (its speed or deflection, respectively) needs to be taken into account. Recognizing and adjusting for these factors were essential parts of proving the theory and then taking it forward.

Then there is the representation of theories. The choice of symbolic expressions to represent “natural laws” after the domain has been specified is reasonably unproblematic—although Newton himself did not use explicit symbols like “G” or formulae for the relationship between the motions of cosmic bodies [ 25 ] . Symbolic expressions are constrained to be “well-formed,” which requires that the modeling team ensures that each operation only runs on valid inputs and only produces valid outputs, defined by the initial primitives and the fixed type structure of the operations that run on them. Again, this scheme lacks the flexibility to capture the kinds of conceptual change that would have been necessary to derive the mature form of the problem. For example, the space of symbolic expressions might include primitives and operations that were discovered in the process of formulating the problem—analogous to providing the symbol i 𝑖 i italic_i before deriving a general solution to the problem of polynomial root finding. AI Feynman does not include primitives for the differential calculus, but the closely related algorithm SINDy does [ 8 ] . In this context, taking derivatives with non-integer powers might be required to capture the diffusion patterns in some data [ 26 ] , but would not be allowed by its predefined type structure.

The kinds of laws AI Feynman can derive are also limited by its processing steps. This is motivated by an analysis of common characteristics of physical laws—they contain variables with units, low-degree polynomial structure, compositionality, smoothness, symmetry, and separability [ 7 ] . But again, these constraints arose out of analysis of the existing laws of physics, and provide constraints that restrict the subsequent class of models in an inflexible manner.

Historical perspective: Maxwell and the electromagnetic field concept

Nancy Nersessian has given a thorough cognitive-historical analysis of Maxwell and the development of the electromagnetic field concept [ 27 ] . In order to make progress given the ill-defined and heterogenous state of electrical science, Maxwell restricted his scope to Faraday’s data on electromagnetic induction and lines of force. In 1855, he gave a rigorous and analyzable form to Faraday’s observations and theoretical postulations using a descriptive mathematical model based on continuum mechanics of stresses in an underlying medium [ 28 ] . From 1861-1864, he tackled the deeper problem of providing a dynamical model that would explain these data [ 29 , 30 ] . He began with magnetic phenomena, and showed that the constraints provided by his descriptive analysis could be fit by a vortex model. From this model he could calculate the magnetic force at any point in the medium by carrying over the system of equations describing the mechanical force exerted and replacing mechanical variables with magnetic ones [ 31 ] .

When he generalized this model to a medium composed of these vortices, however, he found the model unsatisfactory because of the friction caused by adjacent vortices. This brought to mind the idle wheels interposed between rotating machine gears, from which he introduced the idea of idle-wheel-particles to communicate between vortices. Idle-wheel particles provided a good way to model electrical current, so his next step was to include electromagnetic phenomena. But this required the relaxation of the model to allow the particles to translate in conductive medium, and to rotate without generating any friction. Using the new model, he could bring in a set of equations to represent electrical current as the flux density of these particles, driven by the circumferential velocity of the vortices [ 31 ] . Maxwell continued this process of domain relaxation and model building to include electrostatic phenomena and the polarization of light.

A striking feature of Maxwell’s problem solving is how explicit he was about the scope of his theories and the utility of intermediate models. Selectively restricting the domain allowed him to identify which parameters or features of the intermediate model were essential, and an analysis of those features afforded selective expansion of the domain—a process Nersessian has called “generic abstraction” [ 27 ] . Like Lavoisier, Maxwell was guided in this process of abstraction by ontological knowledge about the structure of different physical and mathematical systems, which also helped him sequentially assemble and modify the mathematical expressions underlying the model. Perhaps these idealized models played a role in Lavoisier’s early investigations, albeit in a simpler form involving crude movements of air and changes of weight. This process is not captured by systems like AI Feynman, which are given the problem variables from the mature idealized model, and lack the flexibility to alter their own conceptual systems.

Case Study 3: Protein folding

Several major conceptual breakthroughs led to the “protein folding problem.” The discovery that proteins are linear chains of amino acids goes back to the seminal sequencing of insulin by Frederick Sanger in 1951 [ 32 ] , based on the isolation and recursive extraction of hydrolyzed protein fragments using various media and electrical currents. Evidence that the overall 3D structure of proteins was important for their function, rather than the identity of individual amino acids, 4 4 4 The notable exception to this proposition is the identity of certain amino acids in the active site of enzymes. came from X-ray crystallography of oxygen-carrying proteins [ 33 , 34 ] , the structural effects of natural and artificial variation of amino acids [ 35 ] , and catalytic-rate analyses with different cellular conditions, substrates, and inhibitors [ 36 , 37 ] .

The third development was the specification of the protein folding problem, primarily by Christian Anfinsen Jr. [ 38 ] , who found that ribonuclease A would lose its enzymatic activity in artificial conditions and recover it when physiological conditions were re-established. This led to the “thermodynamic hypothesis” that the correctly folded protein occupied the minimum free-energy state in its natural cellular environment, and provided evidence against the competing hypothesis that proteins folded sequentially as they were synthesized. 5 5 5 There were data that this theory did not apply to—for example, proteins that required enzymatic modification to renature; or assistance during folding by “chaperone” proteins. The remaining step was to characterize the physical process by which the protein folded.

One of the most successful recent discovery algorithms is AlphaFold2 [ 11 ] , which predicts the 3D structure of a protein given its 1D amino-acid sequence (see Box 3). When it was released, AlphaFold2 brought the average molecular deviation for a protein down from 0.3 to 0.1 nanometers, which was precise enough for biologists to make use of.

AlphaFold2’s input is a multiple sequence alignment (MSA), which augments the protein of interest’s 1D amino-acid sequence with additional rows containing similar amino-acid sequences from existing databases. If any of the MSA sequences have already had structures derived, 2D distograms of the pairwise distance between residues and a sequence of torsion angles between adjacent amino acid residues are added to the inputs.

AlphaFold2 outputs a set of atomic co-ordinates, a confidence score in each residue’s position, torsion angles between adjacent amino-acid backbones, the 2D distogram between residues, and a prediction of any masked parts of the MSA. The objective function during training contains a loss term for each of these representations, with the most important components penalizing the 3D deviations of heavy atoms in the amino-acid chain. The loss function during “fine-tuning” contains all of these terms, plus two extra terms that penalize the final structure for violating physical constraints.

AlphaFold2 uses complex heuristics to solve this optimization problem, based on a great deal of biological and engineering knowledge. At a high level, the Evoformer module learns increasingly rich and abstract representations of the 1D primary structure and 2D distogram that the Structure module uses to build a 3D model of the protein. The network is trained end-to-end, meaning all operations are differentiable and the loss signal from the final 3D positions is back-propagated to inform the update of neural networks weights in all operations after the input.

The main biological insight behind the Evoformer module is that information about the 3D protein structure can be derived by comparing its primary sequence with the sequences of similar proteins in different organisms. Some of these sequences might have had their structures discovered experimentally, which can be used directly in the 2D distance representation. But even when no related structure exists, significant covariation of residues in two different positions across multiple organisms is an indication that they are close in 3D space. These 3D dependencies might be quite far away in the 1D representation (the primary sequence), so the inductive bias of attention, which can model longer dependencies [ 39 ] , is more suitable than other deep learning methods. When a particular structure is available, it biases the attention mechanism to learn similar representations for amino acids that are physically close together, and when it is not, the information flows the other way, with the covariance between amino acid positions used to infer the 2D distances.

The Structure module uses the Evoformer’s final representations to iteratively move rigid frames representing each amino-acid residue as close as possible to their ground truth cognates. After residues have been aligned in the main training cycle, refinement steps add the amino acids’ side chains and alter their positions during fine-tuning such that inter-atomic bonds take physically plausible values and no side-chains overlap.

AlphaFold2: Analysis

AlphaFold2’s success comes in large part from the engineering choice of problem statement. In particular, it does not solve the original “problem” of protein folding, the time-evolving movement of the polypeptide chain from 1D denatured to 3D functional state. The authors relax the physical requirements to define a new, related problem: The prediction of a final folded state given the 1D sequence.

This choice was motivated by an abundance of sequence data, which can be used for the new, but not the old, problem. 6 6 6 The MSA can be generated using off-the-shelf tools from genomics, which now have very large sequence datasets. It was also based on a suite of models with the ability to use that information to solve the relaxed problem formulation—deep neural networks with attention mechanisms. The positive consequence of this choice is that some requirements of a solution to the original problem are met—we can predict the structure of hydrophilic proteins with lots of analogous evolutionary sequences well. The negative consequence is that we don’t have a model of the folding dynamics which can make good predictions of the structures of orphan molecules like antibodies, lipophilic molecules with no experimentally derived homologous structures, or the effect of a new mutation or ion on the final folded structure.

The choice of inputs and outputs reflect the new problem. Evolutionary correlations have been used for some time to make arguments about folded structures and function [ 40 ] , but do not obviously inform folding dynamics. And, the pair-wise distogram input has been chosen as a primitive because this is the form required by the algorithm that will be used upstream (attention). AlphaFold2’s intermediate and output representations and transformations constitute a highly distributed theory. The most important engineering choice, in light of defining the new problem, is to partition training into a free optimization period over the residue gas representation, plays to the strengths of deep learning in iterative representation learning and stochastic gradient descent, followed by a fine-tuning stage where physical constraints are met.

Although the scale and complexity of natural biological systems warrants different types of theory and strategies of investigation, including decomposition and localization [ 41 ] , there are also important commonalities—including the use of ontologies [ 42 ] and imagistic intermediate models [ 37 , 40 ] . Conversely, Lavoisier and Maxwell were often tempted to re-specify constraints based on abundant data and a powerful method nearby. 7 7 7 Lavoisier’s use of the Hales’ apparatus and burning lens is a good example of this. We would like AI scientists that can likewise recognize when progress has been slow on a particular problem, but adjacent sources of data and powerful models promise fulfilment on an intersecting set of desiderata. We would also like them to recognize when and how to gather more useful data when there is a mismatch with the use case—as recent improvements on using AlphaFold2 to predict human structures have done.

Understanding the hard problem

The previous sections depict a recurring pattern: Much progress in applications of AI to science has been made, but only with the aid of humans specifying the problem formulation. Thus, these systems are essentially solving the easy problem, not the hard problem. What makes the hard problem so hard?

An important and elusive feature of problem specification is that it is not a data modeling problem. The selection of what to model and and what constraints to condition on are antecedent to any data modeling problem. It is also not reducible to a representation learning problem, in the sense of figuring out how raw sensory input maps to abstract representations. Of course, that problem also needs to be solved, but first the scientist needs to know what problems the representations are being used to solve.

Sociological, aesthetic, and utility considerations enter at the problem specification stage. Building an AI scientist is as much about shaping its tastes, style, and preferences as it is about endowing it with powerful problem-solving abilities. Again, a look at how we train human scientists is instructive: A good graduate advisor educates students about what problems matter, what phenomena are interesting, which explanations count, and so on. These considerations can’t be brushed aside as subjective factors irrelevant to the purely technical problems facing AI systems; they are in fact constitutive of those technical problems. Without them, the technical problems would not exist.

A research program for attacking the hard problem should begin with the cognitive science of science [ 43 ] , focusing on the understudied subjective, creative aspects discussed above and how they interact with the objective aspects of problem solving. However, this presents two immediate challenges. First, how can we gain the conceptual background necessary to understand scientists’ innovations in a short enough time to iterate meaningful research? For most graduate students, arriving at the point where they can begin to generate meaningful and achievable problems within their field takes 2-5 years of dedicated higher education. Second, how can we gather enough results to make statistically robust arguments for any individual problem? There was, of course, only one Antoine Lavoisier.

Cognitive-historical analyses are one approach to deriving such insights [ 27 , 42 , 44 ] . In this methodology, modern cognitive theories are used to build hypotheses about how the scientists were thinking. Historical data can add content or temper these theories, and historical analyses and techniques can be used to make the retrospective analyses relatively unbiased, robust to historical contingencies, and generalizable to new contingencies. At the birth of a modern scientific field, the concepts and measurements are relatively undifferentiated, and can be acquired quickly. They are also, necessarily, edge-cases of creativity, where one or a group of scientists broke away from the normal tradition.

Spending time observing scientists’ behaviors in modern operating laboratories is another way to increase the amount of data available for cognitive scientists to build theories about problem specification. For instance, the construction of intermediate in-vitro models as sources of analogy has been hypothesized to explain the success of scientific research practices in biochemistry [ 45 ] . Studies of scientific collaborations between people from different fields or methodological backgrounds have emphasized the importance of visual aids and hand gestures in providing explanations [ 46 ] .

The birth of the internet and online crowdsourcing platforms has allowed cognitive psychologists to scale up their studies to online experiments where the behaviors of very large numbers of computer-literate participants can be tested [ 47 ] . We can use our insights from cognitive-historical analyses and laboratory observations to design prospective tests of the key computational principles underlying the construction of problems and other aspects of discovery. Indeed, related studies already provide strong evidence that humans construct simplified mental representations to plan [ 48 ] , but have not been extended to the less well-defined problem settings in science. Another rich set of problems come from tests of physical reasoning, in which previous laboratory-based work has identified iterative model-based revision of problem statements as a critical part of deriving a successful scientific solution [ 49 , 50 ] .

Towards scalable AI scientists that solve the hard problem

Once we understand what human scientists are doing with enough precision that we can formalize their activities, we can try to leverage these insights to build scalable AI scientists. At least initially, it is unlikely that these will be standalone systems, but rather more like research assistants or first-year grad students: Curious agents with some technical competence but in need of expert guidance. This guidance can come in the form of natural language instruction, reading curricula, and demonstrations. The growth of models beyond this requires the examination and emulation of the communal aspects of science and related cultural institutions. Lab meetings, conferences, and presentations and discussions are ultimately the place where judgements on the quality of a scientific problem are made.

The use of natural language processing for scientific discovery is at the heart of the recently proposed “AI Scientist” [ 51 ] , which autonomously updates machine-learning (ML) code in order to generate scientific papers. In its inner loop the AI Scientist is given access to the training, testing, and visualization code for a simple ML model and dataset, along with several suggestions of innovative changes to the code and the overall objective of reducing the model’s loss on held-out data. Its outer loop requires that it generate a range of ideas in natural language format, check their novelty using the internet, apply several ideas, write a ML paper for each of the ideas that ran successfully, review the paper, then update the paper. The proposed system comprises a carefully designed interface of language models, prompting schemes, a coding assistant, and templates for papers and conference guidelines. From the examples presented in [ 51 ] , the innovative ideas that the AI Scientist generates are mostly decisions to split variables or processing pathways, add new model components or training metrics based on previously successful strategies in the literature, and combine any of the above that improve the final loss. A particularly impressive part of the work is the ability to implement these high-level conceptual changes in the code example, including producing useful visualizations.

Whether this system and its successors can produce radically innovative discoveries remains to be seen. Do such systems replicate human strategies such as ontologically guided constraint respecification, producing and modifying intermediate models, and re-specifying the problem based on knowledge of adjacent rich sources of data and available models? Natural language is certainly capable of capturing some aspects of the ontological structure of knowledge, and multimodal models should be able to create and maintain imagistic intermediate models of the scientific phenomenon.

On the other hand, many scientific developments, including those we have characterized above, come from a reflective consideration of either how to alter model constraints to capture anomalous data [ 52 , 42 ] , or where an alteration of model constraints affects the domain, borne out over a course of successive investigations [ 22 , 27 ] . Whether current models that decouple in-context and weight-based learning can capture this type of reflective continual learning and selective conceptual respecification will require further investigation [ 53 , 54 ] . For now, humans remain the only intelligent system capable of solving the hard problem. We still have much to learn about building AI scientists by studying ourselves.

AI’s Biggest Challenges Are Still Unsolved

Three researchers weigh in on the issues that artificial intelligence will be facing in the new year

2023 was an inflection point in the evolution of artificial intelligence and its role in society. The year saw the  emergence of generative AI , which moved the technology from the shadows to center stage in the public imagination. It also saw  boardroom drama  in an AI startup dominate the news cycle for several days. And it saw the Biden administration issue  an executive order  and the European Union  pass a law  aimed at regulating AI, moves perhaps best described as attempting to bridle a horse that’s already galloping along.

We’ve assembled a panel of AI scholars to look ahead to 2024 and describe the issues AI developers, regulators and everyday people are likely to face, and to give their hopes and recommendations.

2023 was the  year of AI hype . Regardless of whether the narrative was that AI was going to save the world or destroy it, it often felt as if visions of what AI might be someday overwhelmed the current reality. And though I think that anticipating future harms is a critical component of  overcoming ethical debt in tech , getting too swept up in the hype risks creating a vision of AI that seems more like magic than a technology that can still be shaped by explicit choices. But taking control requires a better understanding of that technology.

One of the major AI debates of 2023 was around the role of ChatGPT and similar chatbots in education. This time last year,  most relevant headlines focused on  how students might use it to cheat and how educators were scrambling to keep them from doing so – in ways that  often do more harm than good .

However, as the year went on, there was a recognition that a failure to teach students about AI might put them at a disadvantage, and many schools  rescinded their bans . I don’t think we should be revamping education to put AI at the center of everything, but if students don’t learn about how AI works, they won’t understand its limitations – and therefore how it is useful and appropriate to use and how it’s not. This isn’t just true for students. The more people understand how AI works, the more empowered they are to use it and to critique it.

So my prediction, or perhaps my hope, for 2024 is that there will be a huge push to learn. In 1966, Joseph Weizenbaum, the creator of the ELIZA chatbot,  wrote that  machines are “often sufficient to dazzle even the most experienced observer,” but that once their “inner workings are explained in language sufficiently plain to induce understanding, its magic crumbles away.” The challenge with generative artificial intelligence is that, in contrast to ELIZA’s very basic pattern matching and substitution methodology, it is much more difficult to find language “sufficiently plain” to make the AI magic crumble away.

I think it’s possible to make this happen. I hope that universities that are  rushing to hire more technical AI experts  put just as much effort into hiring AI ethicists. I hope that media outlets help cut through the hype. I hope that everyone reflects on their own uses of this technology and its consequences. And I hope that tech companies listen to informed critiques in considering what choices continue to shape the future.

In 1970, Marvin Minsky, the AI pioneer and neural network skeptic,  told Life magazine , “In from three to eight years we will have a machine with the general intelligence of an average human being.” With  the singularity , the moment artificial intelligence matches and begins to exceed human intelligence – not quite here yet – it’s safe to say that Minsky was off by at least a factor of 10. It’s perilous to make predictions about AI.

Still, making predictions for a year out doesn’t seem quite as risky. What can be expected of AI in 2024? First, the race is on! Progress in AI had been steady since the days of Minsky’s prime, but the public  release of ChatGPT in 2022  kicked off an all-out competition for profit, glory and global supremacy. Expect more powerful AI, in addition to a flood of new AI applications.

The big technical question is how soon and how thoroughly AI engineers can address the current Achilles’ heel of  deep learning  – what might be called  generalized hard reasoning , things like  deductive logic . Will quick tweaks to existing  neural-net  algorithms be sufficient, or will it require a fundamentally different approach, as neuroscientist  Gary Marcus   suggests ? Armies of AI scientists are working on this problem, so I expect some headway in 2024.

Meanwhile, new AI applications are likely to result in new problems, too. You might soon start hearing about AI chatbots and assistants talking to each other, having entire conversations on your behalf but behind your back. Some of it will go haywire – comically, tragically or both. Deepfakes, AI-generated images and videos that are difficult to detect are likely to run rampant despite  nascent regulation , causing more sleazy harm to individuals and democracies everywhere. And there are likely to be new classes of AI calamities that wouldn’t have been possible even five years ago.

Speaking of problems, the very people sounding the loudest alarms about AI – like  Elon Musk  and  Sam Altman  – can’t seem to stop themselves from building ever more powerful AI. I expect them to keep doing more of the same. They’re like arsonists calling in the blaze they stoked themselves, begging the authorities to restrain them. And along those lines, what I most hope for 2024 – though it seems slow in coming – is stronger AI regulation, at national and international levels.

In the year since the unveiling of ChatGPT, the development of generative AI models is continuing at a dizzying pace. In contrast to  ChatGPT a year back , which took in textual prompts as inputs and produced textual output, the new class of generative AI models are trained to be multi-modal, meaning the data used to train them comes not only from textual sources such as Wikipedia and Reddit,  but also from videos on YouTube, songs on Spotify , and other audio and visual information. With the new generation of multi-modal large language models (LLMs) powering these applications, you can use text inputs to generate not only images and text but also audio and video.

Companies are racing to  develop LLMs that can be deployed  on a variety of hardware and in a variety of applications, including running an LLM on your smartphone. The emergence of these  lightweight LLMs  and  open source LLMs  could usher in a  world of autonomous AI agents  – a world that society is not necessarily prepared for.

These advanced AI capabilities offer immense transformative power in applications ranging from  business  to  precision medicine . My chief concern is that such advanced capabilities will pose new challenges for  distinguishing between human-generated content and AI-generated content , as well as pose new types of  algorithmic harms .

The deluge of synthetic content produced by generative AI could unleash a world where malicious people and institutions can  manufacture synthetic identities  and orchestrate  large-scale misinformation . A flood of AI-generated content primed to exploit algorithmic filters and recommendation engines could soon overpower critical functions such as  information verification, information literacy and serendipity  provided by search engines, social media platforms and digital services.

The Federal Trade Commission has warned  about fraud, deception, infringements on privacy  and other unfair practices enabled by the ease of AI-assisted content creation. While digital platforms such as YouTube  have instituted policy guidelines  for disclosure of AI-generated content, there’s a need for greater scrutiny of algorithmic harms from agencies like the FTC and lawmakers working on privacy protections such as the American Data Privacy & Protection Act.

A new  bipartisan bill  introduced in Congress aims to codify algorithmic literacy as a key part of digital literacy. With AI increasingly intertwined with everything people do, it is clear that the time has come to focus not on algorithms as pieces of technology but to consider the contexts the algorithms operate in: people, processes and society.

From Quick, Draw! and DALL·E to Stretch AI, these tools provide fodder for idea generating, problem solving, and more.

I began exploring artificial intelligence (AI) years ago and quickly understood that it could one day revolutionize how we teach and learn. AI offers myriad innovative tools that can empower students to become critical thinkers, problem solvers, and lifelong learners. From personalized learning to interactive storytelling, there’s a wide range of possibilities in education. Here are five of my favorite ways to use it in my classes.  

1. To teach how AI works There are several fun and engaging tools that are safe for students and allow them to get a better understanding of machine learning. My favorite is Google’s Quick, Draw! The game is like playing Pictionary with Google's AI. Students are given six things to draw, and the computer AI needs to guess what they are drawing. Playing the game is fun, but the real learning occurs after it’s completed. The tool gives you access to the entire database of drawings it has collected from every user. It shows you how it recognizes what is being drawn based on previous input from others. Students leave the lesson understanding the basics of machine learning and how AI requires enormous amounts of data to function correctly. They also learn how AI may be biased based on the input even if it isn’t intentional. The takeaway is that AI only knows what you teach it. When good data is input, AI can be a very useful tool. But if there are biases or errors in the data, it can lead to problems.

2 . For creative  visualization and design Creating or enhancing visuals with text-to-image AI has been a fun activity to collaborate on with students. As an art and media teacher, I never want students to create visuals with AI alone. But using it to pre-visualize ideas and enhance images has been very useful. We’ve tried AI image tools such as Adobe Express , Microsoft Designer , DALL·E , and Canva to add AI elements to drawings and photographs students have taken, create realistic backgrounds for animations students have created, and render images of products that the students invent for marketing campaigns. Adobe Express has added a group of AI tools, some of which can also be found in MagicSchool . A favorite is the 3-D text tool. My students used it to create their own fonts textured with any AI image to introduce ourselves at the start of school with a digital “Hello, my name is… ” sticker as part of an Adobe education challenge. Once students were familiar with the tools, we remixed the project and created AI name tags for famous artists, authors, and characters in their style.

3. For brainstorming and storytelling This is my favorite use of AI with students because it has expedited and deepened the process of ideation. We use it to generate visual elements based on student writing that can expand on initial ideas and approaches in ways students may not have considered. For storytelling use, AI can generate story starters, visual prompts, and discussion questions students can use for inspiration. This is also helpful when paired with collaborative improv games in which the AI is a partner in creating scenes and stories.

4. To foster co-collaborating It may sound like science fiction, but the reality is that many students will likely have an AI coworker in their future careers, so it’s important to prepare them in class today. We experiment with co-creating with AI chatbots when writing and using AI image tools such as Google’s Magic Sketchpad  and Scribble Diffusion . The process is interesting, and like any collaboration, it offers a lesson in communicating clearly and being flexible and open to different ideas and perspectives. This is also useful when creating code, as many AI tools can now compose code for apps and games fairly well. It’s always important to teach students the foundations and syntax of how code works. Once they have that basic understanding, they can collaborate with AI tools to expedite the process and create code together.

5. For research, review, and personalized learning Since AI can manage large amounts of data quickly, it has become an amazing resource for research. But an AI literacy teaching element is key, as all AI is not the same and some tools do not always return accurate information. Tools like ISTE’s Stretch AI  have been developed specifically for educators and add footnotes to its information. This is an improved path forward, but it’s still important to always confirm the sources of the research.

AI is also a fantastic tool to help students review what they have learned, so we use chatbots to provide exit tickets and review questions as a class. Many tools, including educational apps such as Quizizz  and MagicSchool, along with chatbots, can easily generate study questions for students or even assessments based on PDFs, websites, or videos. In terms of supporting students with personalized learning and tutoring, tools like SchoolAI allow students to expand on student learning by naturally following their own curiosities while being monitored by a teacher. (For example, students can "chat" with historical figures about their lives.) Tools like Class Companion  offer data-driven support for each student’s studying based on their strengths and weaknesses.

As new AI tools are coming out all the time, I work collaboratively with my amazing library team and research online to stay knowledgeable. I’m very careful to protect students’ privacy and personal information. Since AI remembers all the data you input, I never have students use it in class without guidance. This technology will likely revolutionize education and other industries. It’s vital to let students experience it in school so they can understand the basics in college and beyond.
